What are the most promising data mining techniques for the future?

Deep learning, a subset of machine learning, has been at the forefront of many breakthroughs in recent years. It excels in complex problem domains where vast amounts of data are available. What makes deep learning particularly exciting for the future is its prowess in handling unstructured data, like images and texts, with unparalleled precision. Neural networks, especially Convolutional and Recurrent types, are driving innovations in various sectors - from healthcare diagnostics to autonomous vehicles. While deep learning demands hefty computational power, ongoing advancements in hardware and algorithms are making it more accessible.

Deep Learning is shaped by its remarkable ability to automatically learn intricate patterns and representations directly from raw data. Its intrinsic capacity to discover hidden patterns is a game-changer, especially in domains where data is multifaceted and dynamic. The adaptability of Deep Learning models to various data types, such as text, images, and time-series data, makes them versatile tools for a wide array of applications in almost every other domain. However, challenges loom, such as the insatiable demand for labeled data and the 'black box' nature of deep neural networks. Balancing its potential with ethical considerations is crucial as we explore this powerful technology.

Reinforcement learning (RL) is reshaping data mining. Unlike traditional methods, RL agents learn optimal strategies via trial and error. By interacting with their environment and gauging rewards or penalties, they excel in complex situations like game playing or business strategy optimization. Combining RL with deep learning offers advances in areas like autonomous driving. But its future potential is vast. Leveraging RL in evolving environments could redefine automation across sectors. However, effectively harnessing RL demands deep understanding and ethical application.

Reinforcement learning (RL) is an essential tool in the Machine learning engineer (MLE's) arsenal. It's a key requirement for many AI applications that require fine tuning of results for real world scenarios, where labelled data is either unavailable or too costly to procure. For example, RL was used to optimise large language models such as ChatGPT, through incorporating human feedback elements to evaluate relevance, accuracy, and coherence of responses. Reinforcement learning in LLMs often involves an iterative process where the model is initially trained on a large dataset (unsupervised learning), then fine-tuned with human feedback (supervised learning), and further refined using RL techniques.

Federated Learning (FL) is a paradigm shift in data mining. Instead of centralizing data, FL trains models directly at the data source, like a user's device. This ensures privacy and reduces data transfer overheads. Especially in our era of data privacy concerns, FL is a beacon. It allows models to benefit from diverse data without raw data exposure. But it's not without challenges: ensuring model consistency and dealing with non-IID data are hurdles. As we embrace an edge-centric computing future, mastering FL will be crucial. It's not just a technique, but a philosophy prioritizing user trust.

There are multiple ways to make your AI explainable: 1. Use algorithms which are easily explainable like Logistics regression and decision trees. 2. Use algorithms like LIME and SHAP to make your AI more explainable. The beauty about SHAP is that you can use any ML algorithm (say neural networks which is hard to explain) and SHAP will still be able to explain it :) Where is explainability required? E. G. In hospitals where you predict probability of person having cancer. It is important for doctor to understand how you predicted the outcome for a patient so that he can see if he agrees or not.

Usually classical explainable models such as decision trees and logistic regressions usually suffer from poor performance when compared to more sophisticated models like deep neural networks. One model that fascinates me is Tsetlin Machine, which offers transparent learning and explainable insights. This models has shown promising results in images and texts. I believe that this model can be pioneering in the field of explainable AI. With simple learning as combination of features and their negation in conjunctive form, it provides word level as well as pixel level explanation for classification. A few things to prioritise when building AI applications to ensure models are explainable: - Explainability tools: LIME (Local Interpretable Model-agnostic Explanations) and SHAP (SHapley Additive exPlanations) are designed for explaining the AI decisions taken by complex models, esp. Neural networks. - Documenting models for transparency: Basic one, but ever so important. It's critical to curate and maintain comprehensive documentation about our model's design, training data, decision-making process, and limitations. - Choice of Models: Not all problems need a Deep learning approach. Models based on Decision trees, linear/logistic regression are inherently more explainable than neural networks and should be utilised where appropriate.

Explainable AI, with its primary objective of rendering artificial intelligence systems' decisions and actions comprehensible to humans, plays a pivotal role in the context of data mining. It serves to bolster data mining endeavors by fostering transparency, accountability, and the establishment of trustworthy data analysis processes and the insights derived from them. Furthermore, Explainable AI contributes to data mining by enabling critical functions like causal inference, debugging, validation, and continuous improvement of data mining models and techniques. Two promising Data Science fields that can be very useful not only to build intelligent systems but also to support decision-making with data-based and solid explanations are: Causality (causal inference, causal discovery, and causal Machine Learning) and Interpretable Machine Learning. In the Causality field, I would recommend The Book of Why (by Judea Pearl) for a solid theoretical base and for a practical approach Causal Inference and Discovery in Python (by Aleksander Molak) seems to be a good start. For Interpretable ML I would recommend the Interpretable Machine Learning online book (by Christoph Molnar)

Some other techniques for data mining that are worth mentioning: AutoML: The idea is to automate the end-to-end process of machine learning, from the raw dataset to the final production ML model for real-world scenarios. These tools allow individuals with no ML expertise to leverage powerful data mining techniques. Anomaly Detection: Identifying unusual patterns or anomalies in data are critical for many applications, e.g. fraud detection, network security & predictive maintenance. This can involve statistical methods (Z-score or chi-square tests) or ML based methods (SVM, Clustering or Isolation forests). In summary, a blend of statistical methods, ML techniques as well as domain knowledge is essential for effective data mining.
