An effective data quality framework is crucial for organizations to successfully navigate the ever-expanding ocean of data. Understanding and defining the various data quality dimensions is key. Indeed, different factors can impact or improve every dimension of data quality. It is also crucial to distinguish between data quality issues that can be fixed a posteriori with technical tools and what issues are caused by data management issues, human error, or misalignment on the data itself. Being critical of the data, open-minded, and documenting data quality issues is key. Not every data quality issue will impact the outcome of the project equally, and it is important to distinguish between issues that are true impediments to the success of the project and the ones that you can live with.

I believe we should exert efforts to increase the level of automation of data quality tools. This will ensure simplicity, transparency and reproducibility. My research focuses on the automated detection of data errors at a scale. By formulating the task of detecting errors as a classification task, we can exploit plenty of ML methodologies and tricks to broadly enhance the accuracy of error detection.

It's vital to emphasize the role of a dynamic, adaptive data quality framework. This framework should not be static; instead, it should evolve with the changing data landscape and project requirements. Incorporating feedback loops within the framework can significantly enhance its effectiveness. These loops allow for continuous monitoring and adjustment of data quality parameters based on real-time data analysis and project outcomes.

A Data Quality Framework is a systematic approach to ensuring the accuracy, reliability, and consistency of data throughout its lifecycle. It involves a set of processes, standards, and tools aimed at monitoring, measuring, and improving the quality of data within an organization.

An important thing to note is that while dealing with text data particularly, the tools and the analysis both have to be structured accordingly. For text data, start with text profiling tools like NLTK or SpaCY to gain a comprehensive understanding of your textual data. While this article mentions different types of tools in a high-level manner, I prefer using a single platform to handle everything instead of interconnecting different tools manually. In terms of profiling, you may do structure, content, and relationship discovery manually if you want, but you may also automate them for production, which is highly recommended to optimize for time and resources. Every project should go through this phase and, unless you already know your data very well, data profiling should be done. Usually this is not the case, as data scientists don't (and can't) know the business of every project. Then, a data profile tool can give you the properties of every column of your data. These properies include data types, number of categories if the data is categorical or ranges if it is numerical, outliers, distributions, etc.

Most of the tools described in this topic assume that you already have a continuous and finely-tuned data source streaming into your project. However, if you're not so fortunate, or if you're starting a project with data from scratch, it's important to visualize your data. This simple step is often overlooked, with researchers diving into summary metrics without a second thought. But summary metrics can be lossy and potentially misleading. Visualization helps to spot systematic problems. For instance, what if all images are rotated or simply garbled? This would maintain the statistics used for summarizing but render the task pointless. One challenge is that the data may be plentiful, necessitating a decision on what to selectively examine.

The key to the data quality assessment lies in understanding of what do the data and their movement represent. Unfortunately, this problem cannot be solved exclusively within tech plane because the data understanding requires in-depth domain knowledge. It means that effective data quality assessment is defined by the quality of inter-domain collaboration and the clarity and transparency of data products definition, which should be shared across organisation. In practice, it often means that there are dedicated teams of enablers who transfer the knowledge from different domains to a central "meta-store". Once there, the data quality assessment can be automated with the observability instruments already used in the organisation.

Data Sampling tools While most common issue in ML is lack of data, there can be cases where you have too large of a dataset and you will have to build a representative sample. There are multiple sampling techniques but I like the probabilistic sampling method which often gives an accurate sample.

Taking domain expertise into account improves the data scientist’s perspective on the data and is sometimes overlooked. Going that extra mile to get a domain expert to give you advice might be the cutting edge needed to obtain better outcomes from your data.

Actually choosing the right tool from all the above depends on the specific requirements of your project, such as the type and size of your data, as well as the specific quality issues you need to address.
