Why train your model from scratch when you can fine-tune a preexisting model. There are many open source tools that you can use to make the model building process easier. Also try to maintain your own set of specialized tools, if none such are available. Make your own toolchains and maintain a suite of functions and libraries that you use repeatedly.

Priorization is definitely one of the most important soft-skills a machine learning professional (and, basically, any other worker) should have, specially, if they work in a company that tends to develop urgent projects, rather than the most useful ones. In these type of companies there is little to no long term planning, and because of that, they make their workers spend their time in daily, frequently repetitive, tasks. If these happens to a machine learning professional, it could be a great approach to propose some mid to long term projects that squeeze to the maximum the data’s value. The daily tasks are very important, however, the value that can be obtained from them is usually far from optimum.

The biggest mistake I see machine learning professionals make is prioritization. It's easy to get caught up in interesting or "urgent" problems - while missing the ones that are most important. The easiest way to complete something quickly is to not have to do it at all. In machine learning, you've got to prioritize what's truly critical for your end users and stakeholders. The tools (Trello, Asana, Jira, etc.) are just a tool in the toolbox. Use the tool that works for your team and focus on making a difference!

Trello is a good way to organize a schedule and optimize your time according to that. You can use the Eisenhower matrix method to prioritize your tasks and plan accordingly. Calendar and to do apps are also really great help in aiding this process.

If possible, it's also handy to have a workstation with a 20GB memory GPU and running with a shrunk version of the model and a shrunk batch size. I find it very efficient to bootstrap a project this way.

Experimentation and iteration has to be the most frustrating and rewarding at the same time. It does not feel good when tuning your LR or other hyperparameters absolutely skyrockets your loss but when through tuning over and over again, trying different techniques, your model finally works better it is really rewarding. Additionally it provides you with a fairly deeper intuitive understanding of what works and what does not work for your models, what data you need to add to your dataset and how can you optimize the learning process more efficiently.

There is a lot of moving parts to adapting Machine Learning into a production environment. Implementing cutting edge algorithms, cleaning data, creating a robust data pipeline for continuous online learning, generating synthetic data for the model to train on (to increase adversarial robustness), etc. As you can understand doing everything is not really feasible for one singular person, so there are things that are beyond your skillset that you should delegate to others in order to more effectively utilize your time and effort.

When it comes to delegate and outsource, a small team with skillful domain experts is often a better choice than a large team with mediocre skills. Skillful team members know where the traps are and can step aside, which is the right way to save time. Identifying long term partners and build good work relationship is also very important. It's a key factor to reduce amortized communication costs in the long run.
