What are some common data modeling challenges and how do you overcome them?

The data use cases have got to be the key consideration as well as the volumes expected. In my experience you should design according to the current known usecases for the data with a view to reviewing this decision further down the line. Modern dbms typically have scaling options so this should not be a big concern

The data model should closely match the real world entity represented. If you're modeling an online store, it will align to a relational database. Whereas a natural system will more align with a document or graph model. Shoe horning a system into a model causes downstream inefficencies - such as frequently adding columns and tables to a relational model, or poor transactional performance on a document database. The other important consideration is your primary storage model doesn't also need to be the same as how you perform later analytics. You can take a highly normalized relational model and denormalize it for analytics. Or you can extract data elements out of a document and into a tabular format.

Before choosing a data model, it is essential to understand your data. This includes identifying the types of data you are working with (e.g., structured, semi-structured, unstructured), the volume of data, and the sources of the data. Next, you should identify the business problem you are trying to solve with the data model. This will help you determine the appropriate modeling technique and the features that are most important. Finally, it is important to consider data governance and compliance requirements when choosing a data model. This includes ensuring that the model complies with any relevant regulations and that data is properly secured and protected.

When choosing the right data model, consider the nature and complexity of your data. For structured and consistent data, relational models excel due to their organized schema. If you're dealing with highly dynamic or varied data, a document model offers flexibility and scalability, though it may struggle with complex queries. For data rich in connections, a graph model shines, enabling intuitive representation of relationships, yet it might not perform well with large, sparse datasets. The key is to align the model with your specific needs: consider data structure, query complexity, and scalability requirements to make an informed decision that balances performance with practicality.

The data model selected has little impact on the data quality. However, it has a huge impact on cleaning efforts. A dimensional model or highly normalized model will make correcting the data much easier, as it only has to be changed in the one location. A document or denormalized model will need thousands of records/documents updated when you discover data quality issues. So, if data quality is a concern, it's best to move data cleansing earlier in the ingestion process, so the ultimately stored records are as golden record as possible once they're stored in the final model.

Conduct data cleansing and validation: Data cleansing and validation involves identifying and correcting any errors, inconsistencies, or missing data in the dataset. This can include techniques such as removing duplicates, correcting errors, and filling in missing data.

Ensuring data quality is crucial for reliable analytics and decision-making. Start by establishing clear data standards and rules that outline accuracy, completeness, consistency, and validity requirements. Validate and verify data sources to prevent errors at the entry point. Utilize data cleansing tools to correct inconsistencies and enhance data quality. Implement robust data governance and security policies to protect data integrity and monitor compliance. Regularly review and update the data model to accommodate new insights and feedback, keeping the data relevant and accurate. This proactive approach helps mitigate errors, improve efficiency, and support informed decisions based on high-quality data.

Consider the maintenance and scalability: Normalization makes it easier to maintain and scale a database as changes can be made to individual tables without affecting the entire database. However, denormalization can be more difficult to maintain and scale as changes to related data may require updates to multiple tables.

The presumption that "normalization can reduce data anomalies" is misleading. Yes, the degree of normalization will likely impact usage and maintenance of the associated data (and the data model itself), but a data anomaly conforming to the structure of the data model will still be present unless data constraints (a.k.a. contracts) are part of the data model, preventing storage. Arguably, unwanted data anomalies should be addressed with data quality measures before storage attempts are made. One important consideration not mentioned here is the specific usage of the data with respect to expected queries. In other words, whether queries will be primarily reads or writes, and what query patterns are likely by users or processes.

Normalization is needed for certain types of data models that cannot tolerate errors due to redundancy such as transaction data. Certain properties are important regarding the data and denormalization removes those properties. It is important to see whether speed due to redundancy or accuracy due to normalization is required as the properties of data models.

Balancing normalization and denormalization is key in data modeling, each serving distinct purposes based on the application's needs. Normalization focuses on reducing redundancy and enhancing data integrity, ideal for transactional systems (OLTP) where consistency is crucial. It involves dividing data into simpler tables, which can minimize storage costs and data anomalies but may complicate queries due to increased joins. Denormalization, conversely, aims to improve query performance and simplify data retrieval by merging tables, beneficial for analytical systems (OLAP) where fast read operations are essential. This approach can lead to better query efficiency but risks data duplication and higher maintenance costs.

Addressing the dynamic nature of data requires a proactive and flexible approach to data modeling to ensure the architecture can adapt to changes without compromising integrity or functionality. The first step is to design data models with future evolution in mind, using scalable and flexible structures that can accommodate new data types and relationships. This might involve using abstract data types, polymorphic associations, or designing for extensibility through additional attributes. Anticipating potential changes involves staying closely aligned with business strategies, understanding market trends, and incorporating user feedback. Implementing effective data migration and conversion strategies is essential when changes occur.

Implementation of version control for databases is just as important as version control for source code. Change management is often cited as a need for human processes undergoing change, and the same holds true for systems. I have implemented Liquibase, for example, at many firms when creating new databases, migrating existing databases, and implementing consistency across database environments. And at my current firm, I had my teams implement Delta Lake format parquet files as part of a data lake to data lakehouse re-architecture initiative so that reads and writes can be executed just like a traditional database, with historical table schemas and stored data still accessible after changes have been made.

Whenever data changes, it is important to update the documentation to reflect the changes. This includes updating metadata, data dictionaries, and other documentation to ensure that everyone who uses the data understands the changes.

An often overlooked point in Data Modeling is how the data is represented in corresponding data change events (CDC). In a modern microservice architecture, a microservice owning data would publish the data changes over a message queue. The structure of messages in this message queue is coupled with the data model it in the database. It is crucial to have well defined models for such messages.

Regular communication with stakeholders is important to ensure that the data model remains relevant and useful over time. This includes providing updates on the data model, soliciting feedback, and incorporating feedback into the data model as necessary.
