The key point to check at the data collection and exploration stage of the project can be stated briefly as: "Data should always be in good shape. The ratio of rows to columns should always be fairly good. Your data should never have more columns than the row, it would be the worst case. Next, is that your data has an equal number of rows and columns, this is still a very very bad format, the curse of dimensionality comes into play in these situations. For instance, homes that were once rented for a certain price (x) may no longer hold the same value due to shifting perspectives and various other factors. Additionally, data drift occurs when the statistical properties of the data, or feature distributions, shift between the training data and the incoming data used for predictions. It's essential to recognize this phenomenon and use methods to mitigate it to ensure the training data correctly represents the new data for predictions.

In my experience, gathering and analysing data is a fundamental step in every data scraping project as I worked on this more. Adapting data gathering techniques to the goals of the project frequently needs gathering data from a variety of sources and websites. But when the data is subjected to in-depth exploratory data analysis (EDA), the true value is revealed. This crucial stage peels back the many layers of data to reveal its underlying qualities, distribution patterns, and structural subtleties.

??Standardization and normalization are fundamental preprocessing steps for many algorithms, especially those that rely on distances like k-means clustering or KNN. However, not all algorithms benefit from this, and in some cases, it might even degrade the performance. ??For example: algorithms like decision trees, random forests, and gradient boosted trees split the data based on certain conditions or thresholds. These algorithms are invariant to the scale of the data. Standardizing or normalizing the data might not provide any benefit and can sometimes even introduce noise, leading to suboptimal splits.

Choosing a preprocessing pipeline is essential to ensure good results. This requires, however, that the machine-learning method(s) to be applied are known beforehand - if you have a tree-based method little preprocessing is required as continuous data standardization is not required and categorical numerical data does not require additional encodings. Additionally, frameworks like XGBoost or LightGBM use ternary, rather than binary trees, giving them the ability to natively handle missing values. Finally, if you are working with string data, CatBoost is the ideal tool as it easily learns how to extract the relevant features from different strings.

Preprocessing and data transformation turned out to be an important step in my data scraping adventure. While hold-out test sets are popular, sometimes it is best to avoid them, especially if one is only focused on estimating model performance - a simple process of cross-validation (nested CV if hyperparameter optimization is necessary) may be sufficient to quantify not only the average performance, but also the expected variation in performance when training models.

Data splitting is a must step in the process. You would never test your student in an exam through the practice question you used to teach them with, right? This case works with testing the ML model also. Training data, validation data, and testing data must have a similar format but you cannot afford data leakage before or at the time of training your ML model. This is similar to letting your student cheat, they would never be ready for the real world. So, always split your dataset before pre-processing and "Never" let your ML model see the test data set before or during training. Otherwise, you would have to experience your ML model failing in silence which can lead to many dangerous and magnified consequences if sent to production.

Finally, think also about prediction coverage, conformal prediction and prediction uncertainty estimation - sometimes it is better to have a model capable of producing confidence estimates so that users have a clearer indication of how trustworthy it is.

Unlike what you see in tutorials, training a model is not a linear process. Not just model hyperparameters but data preprocessing parameters and model selection also have to be iterated on. In many cases, you'll find that one model performs better with certain preprocessing parameters while another model performs better with a different set of parameters. This is also why baselining is so important. Your baseline model should be the simplest model (like linear/logistic regression) with default parameters. The aim of your experimentation with data preprocessing and model hyperparameter tuning should be to beat this model.

In addition to everything that has been mentioned here, I would like to suggest a few questions which you can ask yourself before you proceed to modelling. - With the current data on hand: analyse the model complexity vs model explainability trade-off. You will initially want to start with a much simpler model and progressively increase model complexity along with enhancing the dataset by feature engineering. - Does the performance metric align with business interests? Usually you as a data scientist might be concerned more on the mathematical scores like errors etc, but business might have different interests. - Do you even need an ML model to solve the problem at hand. Can a simple mathematical model or statistical model do the same job?
