What are the most effective ways to forecast time series with machine learning?

Machine learning can model complex nonlinear relationships and interactions in time series data that traditional statistical methods may not capture effectively. It can also handle large volumes of data and automatically learn from the temporal dynamics to improve predictions.

Machine learning is particularly effective in understanding hidden layers of relationships as well and although more computationally intensive, it is more efficient in terms of mathematical calculations of multiple hidden temporal layers and relationships in the data in terms of checking for lags and leads as well, as can be seen in the simple ARIMA models. What can appear invisible to the naked eye, is not so for such algorithms and methodologies when employed.

Machine Learning is a potent tool for time series forecasting as it can be used for programming from basic singular linear relationships to very complex polynomial relationships and finding out the trend from the data. It also helps to find the outliers and their effect on the prediction model. Machine learning also helps to improve the model from the observations and feedback, giving more accurate and less variance answers. There will be some scenarios where there will be a lot of noise present but with the power of reinforcing learning, the model can work around it and will provide accurate time series results

There are a number of apples and oranges comparisons I could make here in comparing traditional statistics versus ML for time series - but in my opinion the largest differentiator is this: machine learning is 'productionalizable'. What I mean by this is that tremendous infrastructure exists to implement and maintain automated machine learning processes, which we call MLOps. What's most important to understand is that while ML approaches are not a catch-all solution for predictive analytics (and we should always check to see if they pass the 'sniff test'), MLOps infrastructure has been designed to support developing solutions for a huge range of predictive analysis problems, including time series forecasting.

I agree firstly you need to understand the characteristics of you data, understand the underlying trends, does it exhibit recurring patterns. By doing so it will help guide your choice of models.

For any machine learning forecasting, it is necessary to have very high-quality data (i.e., fewer NA values, fewer outliers, saved in the proper format, etc.,) to get accurate results. Sometimes, it is also necessary to use mathematical functions to reduce the values in a scale which becomes easy to handle. Most Extract-Transform-Load (ETL) Methods can help with the preparation of data to high quality but it is always necessary to go through the data before taking any step for machine learning as it helps to understand the nature of data present in the dataset and how it is helpful in the scenario of forecasting.

Data should be cleaned and normalized. Time series data often require differencing to remove trends and seasonality. Feature engineering is crucial, including creating lagged features, rolling window statistics, and possibly transforming time series into a supervised learning problem.

I can't say too much about having reliable data PRIOR to pursuing any analytical goals. The data are either useful, or not. You can't fill in holes with anything but best guesses and so do what you can with what you have. More times than not, something interesting can be gleaned from a bag of throw away data. The art is in studying methods and then learning them so well that things in the data jump out at you once you realize there are many ways to look at, present, and scientifically evaluate data. Also, no results are interesting too, all the “no result” trials add up… the fewer things future scientists have to attempt and fail.

There is no right answer for that. It really depends. What I would actually make sure is to have high quality data. When you have that, you want to use prophet or ARIMA as they are pretty easy to implement. These methods are not great at catching trends and spikes but def work if you don’t need high accuracy. There are some low-hanging fruits like simply cleaning up erroneous values or dropping outliers - and more complicated techniques like feature engineering or denormalization can yield better downstream results from a model. Most every extract-transform-load ( ETL) tool or methodology out there can handle data preparation. My advice? Data should be prepped as soon as possible. When it comes to MLOps, it's 'garbage in, garbage out' - so give yourself a break and clean up your data right away.

Well, some various methods and algorithms can be used for training and evaluation of machine learning models but there is no one-for-all algorithm that can fit in any ML time series forecasting model. One of the major processes that I feel is required to be used in all the methods and algorithms is to divide your data into training and testing sets, which would help you evaluate the machine learning model.

There's a lot of ways to do this, and there's no one-size-fits-all approach. But here's a rule you generally do not break: you should always evaluate your model against 'unseen' data. That is, your model should not be tested against data that was used to train it. There are complex statistical reasons behind this, but think of it from an intuitive sense: a model that accurately predicts what it already knows to be true is at-best useless and at-worst overconfident - which can have disastrous consequences for predictions.

Deploying the model can be done in various ways like generating a model file, which can be called from a .exe file and give the desired outcome or maybe like a web app where you can provide the data directly in the model and provide the outcome. So, in production, it depends on what environment will the application be used and how it will provide the outcomes.

Deployment is a huge subject and difficult to fit into 750 characters, but these days this would usually mean deployment onto a cloud service provider like AWS, GCP, or Azure. Most providers offer some degree of what we call MLOps (akin to DevOps) which provides end-to-end architecture and management of ML resources. In certain scenarios, the incorporation of external variables that can influence the time series adds another layer of precision to the forecasting process.

I am still a beginner in the field of machine learning, using a learn from anywhere and anyone approach. I felt that using a more simplistic approach like ARIMA (Autoregressive Integrated Moving Average) allowed me to create a good foundation of the basics.
