Tests and assessments can have measurement errors, validity issues, or cultural bias. Administrative records can have inaccuracies, incompleteness, or outdatedness. For example, data compatibility refers to the ability to merge or link data from different formats, systems, or platforms. Data alignment refers to the consistency and comparability of data across different levels, units, or time periods. Data security and privacy refer to the protection of data from unauthorized access, use, or disclosure. Data consent refers to the permission and agreement of the data providers or subjects to participate in the research and share their data. Therefore, it is important to plan and implement data integration and management strategies that ensure data quality, integrity, and compliance.

Having worked with the largest real world datasets and merged them (Global weather, air pollution, and US national cancer registry), I believe this is an inevitable issue. In terms of unit compatibility one has to make decisions at this stage regarding a common unit level among the merged datasets which could help inform data analysis models. Meaning, if one merges data using county fips, in regression models one can account for clustering at Fips to avoid biased estimates. Another inevitable problem would be measurement and mispecification errors, as merging datasets for area level information with individual level dataset causes ecological fallacy especially in epidemiology studies.

Missing data refers to the absence of data values for some variables or cases. Outliers refer to the extreme or unusual data values that deviate from the rest of the data. Assumptions refer to the conditions or criteria that the data or the methods must satisfy for the analysis to be valid. Limitations refer to the constraints or caveats that affect the generalizability or applicability of the findings. Therefore, it is important to conduct data analysis and interpretation with care, transparency, and rigor, and to report and communicate the results with accuracy and clarity.

Additionally, sampling bias and the presence of irrelevant variables may hide genuine trends or patterns within the data. We must remain vigilant against interpretation bias, ensuring that conclusions drawn from the data are objective and evidence-based.

The categories we look for in data quality are: - Completeness; do you have 100% of the data needed to assess the results? - Consistency; are you capturing the correct data? - Timeliness; is the data up-to-date? - Uniqueness; is your data tracked to each student/teacher/user individually? - Integrity; is the data reliable and trustworthy? - Validity; is your formatting consistent across tables and resources, so that you can compare easily?

I could not agree more with Sarah's excellent list of data quality criteria. For any column of any dataset, make sure that you follow her checklist, and outline a similar one for the table as a whole. This will increase the overall quality of your datasets in a really big way.
