1 Types of RL algorithms

RL algorithms can be broadly classified into two types: value-based and policy-based. Value-based algorithms learn a value function that estimates the expected return for each state or state-action pair. They use this function to select the best action in each situation. Examples of value-based algorithms are Q-learning, SARSA, and DQN. Policy-based algorithms learn a policy function that directly maps each state to a probability distribution over actions. They use this function to sample an action in each situation. Examples of policy-based algorithms are REINFORCE, A2C, and PPO.

Model-Based Reinforcement Learning is useful in the scenarios like below: We've employed Model-Based Reinforcement Learning to train one of our models for adept and precise manipulation of objects. Rather than relying solely on trial and error with direct interaction in the physical environment, a learned model of the environment was utilized. This approach mitigates the time and resource-intensive nature of the traditional trial-and-error process.

Important thing in RL is data and it’s volume. Better the data and volume better the training and of course the results As a human, we all try to improve ourselves based on the data given to us same logic is applied here as well. quality of data is very important factor here. Once we have this, we can then proceed and find out what type of situations are there and it’s occurrence.

2 Exploration vs exploitation

One of the key trade-offs in RL is between exploration and exploitation. Exploration means trying out new actions that may lead to better rewards in the future. Exploitation means sticking to the actions that have yielded the highest rewards so far. Both are essential for finding an optimal policy, but balancing them is tricky. Too much exploration can waste time and resources, while too much exploitation can miss out on better opportunities. Different RL algorithms use different strategies to balance exploration and exploitation, such as epsilon-greedy, softmax, UCB, or intrinsic motivation.

3 Model-based vs model-free

Another important distinction in RL is between model-based and model-free algorithms. Model-based algorithms use a model of the environment dynamics, such as the transition probabilities and the reward function, to plan ahead and evaluate actions. Model-free algorithms do not use a model of the environment, but rely on direct experience and feedback from the environment. Model-based algorithms can be more efficient and generalizable, but they require a accurate and complete model, which may not be available or feasible for complex or stochastic environments. Model-free algorithms can be more robust and scalable, but they require more data and computation.

4 On-policy vs off-policy

A further aspect of RL algorithms is whether they are on-policy or off-policy. On-policy algorithms learn from the same policy that they use to generate actions, while off-policy algorithms learn from a different policy than the one they use to generate actions. For example, Q-learning is an off-policy algorithm that learns from a greedy policy, but uses an epsilon-greedy policy to generate actions. On-policy algorithms can be more consistent and stable, but they may suffer from high variance and bias. Off-policy algorithms can be more flexible and efficient, but they may face challenges in convergence and exploration.

5 Continuous vs discrete

The last aspect of RL algorithms that we will discuss is whether they deal with continuous or discrete action spaces. Continuous action spaces allow for any possible action within a range, such as steering angle or throttle level. Discrete action spaces allow for only a finite number of actions, such as left, right, or stop. Continuous action spaces can be more realistic and fine-grained, but they also pose more difficulties in optimization and exploration. Discrete action spaces can be more simple and convenient, but they also limit the expressiveness and precision of the policy.
