What are the best practices for evaluating the performance of a deep learning model for image classification?

Cross validation is very important. From my experience of machine learning, a few things to consider when doing k-fold cross validation. 1. Select a reasonably large k 2. Make sure that there are no identical data points which are present in both train, validation and test subsets. 3. Make sure there are no implicit data leakages between the different data subsets. 4. Make sure to have separate validation and test sets.

In my experience, it is always recommended (if possible) to have test sets from 2 or more sources to remove bias. This also helps with overfitting problems.

.. Cross validation's importance cannot be overstated .. One more trick worth trying is monitoring how your model's error patterns change with more data and training can help fine-tune your approach for better image classification results. Continuous analysis and visualization are key to improving deep learning models.

Cross-validation and test sets should be carefully selected. Randomization in cross validation like K-fold is a good solution. On the other hand, test set shold be completely free from bias. For example, if you have different images from animal posture for different animal in training and cross-validation set, you should keep test set from completely diffrent animals. This will allow more generalisation ability of the model.

In my experience while evaluating production models it is useful to have a wide set of test datasets that can be representative of your final production environment. Even when the model generalizes there are always corner cases that are not represented or taken into account by the metrics of your test set.

I think comparison with baseline should be starting point. Therefore, create a full pipeline with off-the-shelf components and models to get a baseline result. Subsequently, you can start to modify settings, data and swap additional components in and out of the pipeline to observe their impact on the result. Always document the modifications you are doing and their impact on results so that you can objectively analyze which changes were better and had a major impact on your results.

Qualitative analysis is useful for large amounts of unannotated data. It may be helpful to find patterns in your model and verify overall performance.

Track your records and keep adding up till you get certain accuracy. Fine tuning model with comparing results from test set is perfect way.

Documentation is very important. Additionally it is important that you pick a mode of documentation which is both sustainable and repeatable. My suggestion would be that for the beginners having something as simple as a spreadsheet as the tool and setting aside 15 minutes near the end of each day may be enough for documentation. As long as you make sure to perform your documentation everyday. In terms of what to document, bare essentials would include name of the experiment, changes to settings/parameters and architecture. Which train and test sets were used along with summary of results should suffice for the beginners. For production setups, one can start exploring more intricate tools for documentation.

Take some liberty, most of the DL problems, including computer vision, do not have evaluation norms. Try to use common datasets that are used a lot in research papers to be able to compare to others, but do not focus on beating the metrics provided by others. You should focus on the metrics that are relevant to your application and customers usage. Sometimes, it’s not interesting to focus on optimizing the general precision / recall instead of focusing on one particular class: of the application is a cancer classification, having 95% of recall on the ??aggressive?? class is way more important than reaching 98% on the general weighted f1-score if the model only detects 70% of the malignant tumors.
