What are the best practices for ensuring the quality of cleaned text data?

Imagine having a dataset with over 400 columns, and you're aware that working with all of them at once will be time-consuming and may not necessarily yield accurate results. In such cases, you initiate feature selection. This often involves creating a correlation mapping of coefficients. One key question arises: what to do with highly correlated variables? Do you retain all of them, or is it better to eliminate one? Similarly, how do you handle loosely connected variables? These are just a few initial questions you'll need to address. It's not just about observing the data and its variables; it's about refining it to enhance its effectiveness for the model.

I find it less obvious how to properly conduct EDA on text. Some methods that I often use and learned the hard way are: 1. Word-level analysis (word length, syllable count, POS distribution, most common words, most common first n-grams in the sentences, etc) 2. Sentence-level analysis (sentence length, most common POS n-grams, is the sentence passive or active voice, etc) 3. Other statistics, like language distribution, sentiment analysis, topic distribution, and so on, can also be useful. But the most crucial part of understanding the text data, just as with any data, is to use a rigorous, scientific approach, i.e. first formulate a good hypothesis, then try to validate it with the data at hand, and finally draw some conclusions. Repeat.

You should also understand the problem you are trying to solve, with the business questions. It is important to make sure that the data can solve it, before going any step further.

Evaluation of text tools leads us to the problem of choosing text samples in case of huge text. Here comes statistical methods. For example we can choose the most differentiated subsets, but generally we should create f.e. 1000 subtexts and cluster them to choose f.e. only one subtext from 50 clusters which enables quite fair evaluation on just 20 fragments as testing NLP methods is very hard and time consuming.

Maybe a hot take for some, but in my experience using a Jupyter notebook for experimenting on data cleaning and processing can be beneficial IF AND ONLY IF these experiments are small, and their outcome is summarized into a markdown section right after the experiment’s outcome. I find this code + documentation approach better than writing separate documentation pages post-factum because of two reasons: 1. It shows both what worked and what didn’t. People are often biased against reporting bad results. This is counterproductive because failing to report what didn’t work often results in the same mistakes being repeated after a few months. 2. Treating Jupyter notebooks as documentation makes the “Why?” of technical decisions/outcomes clearer.

Secondary, within collaborative realms, these tests avert potential overlapping alterations, thus circumventing possible data anomalies and safeguarding uniform results. Consider outputting results from your cleaning process to log or text files that you can refer to in the event of an error or unexpected result.

Before running statistics on the cleaned text output, I believe it's important to take a step back and have an idea of what that output should look like to start with. While some data might not have a key or list of text that we're trying to match up to, a lot of text labels do. For example, we can check text using spellcheck. Or if we're using a list of names or geographical places, can we compare our own output to an official list?

After cleaning and preprocessing text data, it's essential to validate the output to ensure it meets your expectations and requirements. This involves checking for accuracy, completeness, consistency, and relevance. Validation can be done through methods such as manual inspection, descriptive statistics, visualizations, or model evaluation. Using an MLOps pipeline can help you detect data changes, by making sure that the distribution didn’t / did change with time. This is a critical thing to ensure that the models you provide are still up to date, or aren’t performing as good as previously. Staying up to date is key to gain time and efficiency.

To maintain the relevance and accuracy of your data, it's essential to regularly update it. Text data is dynamic and continuously evolving, just like your objectives and requirements. To achieve this, you should constantly monitor your data to ensure it aligns with the most recent trends and developments within your domain and among your target audience.
