How does feature selection impact your machine learning model?

I have an interesting story that explains the importance of feature selection beautifully. There was a pre-developed model that I was assigned for maintenance. It used generic features (total 117) built for every domain of the business to train a logistic regression model. 58 of them were selected using IV and correlation filters. With these settings, the model took 4 hours to train on 700k rows. After analysis of top weighted features and discussions with domain experts, I found one particular business domain affecting the target variable the most. I built 8 specific features explaining different parts of that specific business domain and BOOM... 23 minutes to train with a 3% increase in accuracy. That means MORE THAN 3 HOURS SAVED!

Feature selection is important for many reasons. But the fundamental one is this: features in production are costly. You cannot have 5000 features where 90% of them contribute .001% to your model results. So you need to select the best features that explain and predict the model and use them.

More is not merrier when it comes to features used in ML training. Unnecessary features, highly, interacting features, & correlated/dependent features add uncertainty, reduce model robustness & adversely impact model performance respectively. Other cons include increasing computational performance during training by adding that many more dimensions to the distance calculation or derivatives thereof & further entangling the solution in curse of dimensionality. Several concepts arising from statistics & information theory can be used to selecting only those features absolutely essential for prediction, we get best performance for least computational effort. Traditionally, 3 supervised feature selection (FS) methods exist: filter, wrapper & intrinsic. Conceptual grouping of methods are different. Guiding principle of FS: 1. Features should be as less correlated/dependent among themselves 2. Features should be highly correlated/dependent with the target. Conceptual grouping 1. Correlation methods: Correlation is a linear dependency measure. Individual (p-value of coefficients) and/or collective (p-value of F-statistic) linear predictive power of independent variables should be high. 2. Based on type of dataset and problem statement respective feature selection method will be applicable. As in mentioned in article there are three types of feature selection method - filter, wrapper and embedded methods. And these will be used as per require datasets. And help to remove unnecessary features and divulge the feature traits which help in model training.

Once it's done then need to understand the what will be impact of feature on model performance and the last finally need to explain and analyze the feature with target variable.

Agreed!! Feature selection is one of the most challenging task and vital step while building the machine learning models. Based on dataset feature size it can be expensive as well. To tackle such challenges we can use data cleaning, outliers detection, data visualization which help to understand feature behavior. Automating this process can also help while there are numerous features present in dataset.

Feature selection can be challenging, such as 1. Information Lost: removing features might lead to the loss of information that could be valuable for the model. It's important to carefully evaluate the importance of features or incorporate domain knowledge into this process. 2. Overfitting: if the feature selection somehow tailors the features to a specific aspects of the training data or a set of model parameters, overfitting might occur. Utilising cross-validation to ensure the model that is trained on the features generalise well to unseen data. 3. Streaming Data: the relevance of features can change as new data becomes available (i.e. data drift). Hence, regularly review, update, and automate the selection process can be challenging.

In my opinion domain knowledge also play crucial role in feature selection. Having good domain knowledge in respective problem statement area help to understand which features will be having more impact.
