What role does a data lake play in machine learning and AI projects?

A data lake serves as a vast reservoir for storing raw, unstructured, and structured data from various sources. In machine learning (ML) and AI projects, data lakes play a pivotal role by providing a centralized repository where large volumes of diverse data can be stored, accessed, and analyzed. This abundance of data fuels ML and AI algorithms, allowing them to train on extensive datasets to recognize patterns, make predictions, and derive insights. Additionally, data lakes enable data scientists and analysts to explore, experiment, and iterate on ML models using rich and diverse data sources, leading to more accurate and robust AI solutions.

A data lake is a storage location which is used to store all types of data like Structured(csv files, Excel sheets), Semi-Structured(xml, json, Log files) and Unstructured data(audio, video)

The entire idea behind data lake, especially the "layered" approach (raw->refined->curated) provides a way for ML Engineers and Data Scientists to have access to the unmodified, most detailed data (raw layer) where they can conduct experiments, perform data mining and so on - and as a result of such experiments, form requirements to propagate the required pieces of data to next layers. This is contrary to the typical DWH approach, where DWH represents "curated" data only, which is formed without raw data understanding from data mining and experiments.

The typical (or ideal) workflow with data lake looks like the following: - source data is ingested to the DL in the raw form (Raw Layer) - Data Scientist performs data analysis, conducts experiments - and uses the raw data since in this way she has access to the most detailed view of the data - based on the results of the experiments, the Data Scientist together with the Data Engineer can form requirements - what data is needed for the ML Use Case, how it should be cleaned and transformed - the rules are implemented as data is propagated to the refined and curated layers - the ML experiments are productionalized - interactive notebooks are transformed into jobs, raw data usage is replaced with newly created refined/curated datasets, etc.

One of the great features of the Data Lake is that the data can be stored in different formats. While it would be challenging to store vectors, images, or audio sequences in DWH, Data Lake allows it - so the amount of ML Use Cases allowed with Data Lake is much greater.
