What are the main challenges of securing AI/ML systems from cyber attacks?

Securing AI/ML systems from cyber attacks is challenging, especially due to data poisoning. This occurs when the data used to train or test models is intentionally or unintentionally corrupted. Such corruption can impact the accuracy, reliability, and performance of the models, leading to biased or malicious outcomes. For instance, an attacker might inject harmful data into a facial recognition system to avoid detection or into a spam filter to bypass it. To combat this, security teams must monitor and validate data sources, ensure data quality and integrity, and use data cleansing techniques to prevent or reduce data poisoning.

Data poisoning presents a significant challenge in AI/ML security, especially when dealing with large datasets that may come from diverse and potentially untrustworthy sources. In my experience, ensuring the integrity of training data is crucial to maintaining model accuracy. During a project involving a predictive maintenance system for a manufacturing client, I encountered a situation where malicious actors attempted to inject faulty sensor data. This would have caused the model to produce false predictions, leading to costly production delays. This can exploit the vulnerabilities of the models, causing them to produce incorrect or harmful results. For instance, an attacker might alter a traffic sign image to mislead a self-driving car or generate fake news to manipulate public opinion. To combat this, security teams must test and evaluate models for robustness and resilience, and use adversarial defense techniques to prevent or counter such attacks.

Adversarial attacks can be particularly insidious, as they exploit the inherent vulnerabilities in AI/ML models. One real-world scenario I dealt with involved an attempt to deceive an image classification system used in a retail security application. The attacker subtly altered product images to fool the system into misidentifying items, potentially allowing theft to go undetected.
