What do you do if your machine learning models lack logical reasoning abilities?

Current ML models often prioritize patterns over logic. Here's how to bridge the gap: Symbolic AI Integration: Explore integrating symbolic AI techniques, like rule-based systems, to inject logical reasoning into your models. Focus on Interpretability: Prioritize building interpretable models. This allows you to analyze and refine the reasoning processes behind the model's outputs.

1. Check Is Data Comprehensive? does it contains all features that can represent the problem? Feature Analysis for Correlation and Prioritization would be key 2. Complexity of Model: Is the model too simple to learn anything, are we using right ML architecture 3. Is the training sufficient, is the loss could be decreased more, is the loss function correct, can it be modified for use-case? 4. Are we training from scratch? is it have to be from scratch? or baseline weights can be arranged for transfer learning 5. Double check evaluation metrics, Incorporate Qualitative results, don't rely only on Quantitative metrics.

As a seasoned data scientist, my initial focus is on enhancing data quality by meticulously examining the dataset. Following this, I delve into feature engineering to optimise the dataset's variables. Ultimately, I employ model explainability techniques, encompassing both global and local perspectives. Globally, I elucidate the overarching behaviour of the model, while locally, I analyse individual instances and features to discern their specific impact on the outcomes.

To effectively tackle the absence of logical reasoning in your models, it's imperative to diagnose the underlying issue, a principle I firmly support. From my perspective, conducting a thorough examination of the training data is essential. Consider whether it accurately reflects real-world scenarios the model will encounter and scrutinize for biases that may lead to illogical conclusions. Additionally, evaluating the model's architecture is crucial. Certain models, such as decision trees, inherently offer more interpretability and may exhibit better logical reasoning capabilities compared to others, like neural networks.

It comes down to the definition of decision making. Are you looking to build a decision tree, that makes human-like decisions? Or are you focused on the interpretability of a model's decision-making process, say for a cat vs dog classifier? Understanding how a model can contribute to a company's bottom line is crucial for determining how good it is. A chatbot responding to a user's input in a logical way is different from the internal logic used by a Convolutional Neural Network (CNN) to classify an image. Understanding what you require from a model will accordingly help you fine-tune it.

Augment the training data with examples that require logical reasoning. This can help the model learn to generalize logical rules and patterns from the data more effectively.

Refining the dataset enhances the models' logical reasoning capabilities. Ensure the data accurately reflects the logical relationships and sequences critical to the problem domain; for complex reasoning tasks, like in NLP or strategic game playing, including data explicitly demonstrating logical outcomes or rule-based is useful. Cleaning the data to remove noise and irrelevant information helps the model focus on the essential features that underpin logical reasoning, leading to more accurate and logically proper predictions.

Trying the following steps may help: ?? Refine the dataset by correcting the labels ?? Remove noises from the dataset ? Add a broad coverage of logical data points ?? Check if the hyper-parameters are correct and adujsted for the data ?? Check if the learning is improving and loss is decreasing and adjust hyper-parameters accordingly. ?? Try different models

Many a time I think data refining depends on the quality and quantity of data along with the outcome your business is trying to get to. It's extremely subjective. For example, in my work, I used to consider any result with less than 99.9% accuracy trash, because it then means that more than 1 in 1000 users are facing problems. So instead of trying to feed all the training data in one go, I personally used decision trees using a combination of python/SQL to create segmented training data. If in the majority of my training data segments I achieved 99.9+% accuracy, then it was passed since it saves people time. The rest of the data segments could be looked at later or sent for manual review. Again, very subjective use case.

In my experience, below points helped for different kinds of datasets: 1. Data augmentation techniques for text, image and structured data. 2. Synthetic data generation using generative AI and simulations. For eg: In autonomous driving, simulations can create diverse driving situations requiring complex decision-making and reasoning. 3. Insights from domain experts. 4. Ensure the dataset encompasses a wide range of domains, scenarios, and perspectives. 5. Utilize knowledge graphs to add structured knowledge about entities and their relationships to the training data. 6. Generate adversarial examples that specifically target the model's weaknesses.

There are multiple technical approaches that have been documented in feature engineering from auto feature generation, to data definition etc. The one piece I want to add is understanding of the context /business rationale of the problem and understanding of domain in which the problem is being solved. Often data scientists get into the loop of transformations, reengineering but not get into the interpretation of the features, logical rational to use the feature in the model and its interdependencies on the dependent variable.

Feature engineering the processing of raw data to create informative features that enhance model performance. For example, in natural language processing techniques such as TF-IDF or word embeddings can be used to convert text into numeric representations so that the model understands textual data more effectively. Similarly, in image recognition tasks, it is possible to get feathers like edges, textures and shapes through techniques such as CNN's which help the model recognize objects with high accuracy. Ultimately, domain knowledge is a key factor guiding relevant feature extraction. This could include patient demographics, medical history and lab results as features.

We can use feature engineering to make better understand between logic and relationships by the model. This understanding of inherent rules and relationships within the domain, makes new features that encode logical dependencies. Also we can use some advanced techniques like temporal feature engineering (A method encapsulate concepts of order, sequence, and causality which designed for time-series data) and graph based features (representing data as graphs to represent relationships that relevant for logical inference). Now there's a technique that use KGs with LLMs to give more reasoning capabilities.

It is not a surprise at all if a bad model lacks reasoning ability. With a good model training and evaluation, if a model still lacks reasoning ability, it is good to check the feature leakage, as it will make training and testing metrics perfect. As the model objective or future data is leaked in the feature, the model will not learn the expected reasoning logic well.

Feature engineering provides the models with the tools needed for logical reasoning by creating features that encapsulate logical relationships or highlight essential sequences in the data; you can influence the model's ability to infer and apply logical rules. In a chess game analysis, features representing the board's state regarding potential threats or defensive positions can help a model learn strategic reasoning. In text analysis, features capturing syntactic structures or logical connectors (e.g., "therefore", "however") can help in understanding the logical flow of arguments.

Selecting or designing models that are well-suited to capture logical reasoning can lead to improved performance and interpretability, addressing the issue of lacking logical reasoning abilities in ML models.

A few years ago, ML practitioners used to spend a lot of time on model selection, feature engineering and training data. Now Foundation Models are the way to go. The challenge now is which model can be used with minimal tuning and how to prompt them to get the right answer. Use benchmarking data / leaderboards to narrow down your choices, follow recommendations from others but thoroughly test on your own data.

Selecting a model that has a reasoning capabilities is not a straight forward step. You will need to consider several factors based on your problem statement. Using decision trees models like (Random Forests, GBM, XGBoost, Stacking ... etc) will help you in case the logic to be incorporated is mainly depend on the data and relations within them. If the logic is more related to the processing steps then you might consider using reinforcement learning and adjust the agent's decision making behavior with custom reward function. You can also use models based on transformers and benefit from the attention mechanism for better capturing of dependencies and relationships in data.

Selection of the right model is the crucial part to get insight of data. It 's the primary goal to first select a qualified model based on business and use cases. For example Based on classification, predictive or image processing you need to choose a model and then it will give some meaningful insight.

Explainability tools offer insights into the mode's reasoning processes. SHAP or LIME help interpret the model's decision-making, highlighting which features contribute most to its predictions. Understanding these dynamics can identify gaps in the model's logic and reasoning. If a model incorrectly classifies text sentiments, explainability tools can reveal whether it's overly reliant on certain words while ignoring the contextual logic that alters their meaning, guiding targeted improvements.

Be careful when using explanations. SHAP, and LIME often contradict each other. Consider using interpretable models like decision trees, and explainable boosting machines instead.

Data that exists, is factual and relevant doesn't always output a trust worthy output in all cases. Factors affecting the rational of the model from data manipulation and association, even before ingesting and evaluation are able to leverage the performance of the model by: - adjustment of parameters affecting prediction (how much) - relevance of factors (when, where) That's why its important to have tools to identify factors and assist the evaluation process.

These tools play a crucial role in enhancing the transparency, interpretability, and trustworthiness of machine learning systems, especially in domains where model accountability and fairness are paramount. Incorporating explainability tools such as LIME (Local Interpretable Model-agnostic Explanations) and SHAP (SHapley Additive exPlanations) can illuminate the decision-making process of AI models. These tools demystify the model's logic, highlighting the impact of various inputs on its predictions. Understanding these dynamics allows for targeted adjustments, enhancing the model's logical reasoning capabilities. Regularisation is the very core part of the whole process of Data Fitting. It totally depends on How the data is fitting, is it Overfit or Underfit and using L2 Regularisation or Dropout Regularisation or Data Augmentation. Also how Bias-Varience Tradeoff is balancing, we have to take care of that also.

Integrate logical constraints or rules directly into the learning process, encouraging the model to adhere to known logical structures or outcomes. This is effective in domains where the underlying logic is well-understood but complex, like legal reasoning or biochemical interactions. The model is ' regularized ' by defining loss functions or penalties that reflect deviations from these logical rules to favor statistically useful and logically consistent solutions.

In my opinion , using logical regulation , particularly for the expert domain is a good way , it protects our model from many biases , and using this way can help us to have a more reliable model

In my experience, applying logic regularization in machine learning significantly boosts the model's dependability. By introducing penalties for any illogical predictions during the training phase, it ensures that the model's outcomes adhere to established logical rules within the data, enhancing both the trustworthiness and interpretability of its decisions.

There is no one-size-fits-all solution. It may require a combination of different strategies or developing new ones to suit the specific needs of your use case.

Consider incorporating domain-specific knowledge / Rules-based systems to complement the machine learning models and enhance logical reasoning capabilities. Domain experts can provide insights into the underlying logic of the problem domain, which can be encoded into the model's architecture or used as constraints during training. Ensemble methods or hybrid approaches combining symbolic reasoning techniques with machine learning models may offer improved performance in tasks requiring logical reasoning. Regularly assess model outputs and solicit feedback from domain experts to iteratively refine the model's logical reasoning abilities.

You have to always remember that ML problems by themselves are open-ended (else we 'd be able to solve them with an exact science like physics), always admit more improvement and constraining the problem through business understanding is of paramount importance. A solution that is 'good enough' might be fit for purpose. But you do need to be able to quantify 'what that purpose is' The techniques that we use and the 'level of logical reasoning' achieved, should be justified by ROI and tailored to a quantifiable "what success means for the business".

Despite the high cost and workforce, the human-in-the-loop approach is worth considering to increase the model's logical reasoning ability. Expert feedback can handle biases and correct errors, as humans excel in complex situations, which often prove difficult for pure algorithm approaches. Besides, specialist guidance helps to ensure quality and mitigate the risks associated with automated decision-making. However, one must consider its risk as the approach may suffer from overfitting of human feedback if excessive human intervention is given, which eventually leads to a reduction of the model's generalization performance.

Create test cases that specifically target the model's ability to reason logically or generalize to unseen logical patterns.
