1 What is bias and variance?

Bias and variance are two sources of error that affect your model's predictions. Bias is the difference between the average prediction of your model and the true value of the target variable. A high bias model means that your model is oversimplified and misses important patterns in the data. Variance is the variability of your model's predictions for different data sets. A high variance model means that your model is overfitted and sensitive to noise and outliers in the data.

Bias and variance are pivotal concepts in understanding model performance. Bias indicates how far off our model's predictions are from reality, reflecting oversimplifications. High bias can lead to missing crucial data trends, resulting in systematic errors. On the other hand, variance measures how much our model's predictions fluctuate for different datasets. High variance suggests our model is over-attuned to the training data, capturing noise rather than the underlying pattern. Striking a balance between these two is essential, as they represent the trade-off in model complexity: too simple and we risk high bias, too complex and we invite high variance.

In Healthcare, bias is a nuanced issue. While unchecked bias can compound existing disparities—overlooking the needs of marginalized groups—bias might sometimes emerge from local implementation. 2 Why is there a tradeoff?

Ideally, you want to have a low bias and low variance model that can capture the complexity of the data and generalize well to new data. However, in practice, there is a tradeoff between bias and variance. As you increase the complexity of your model, such as adding more features or parameters, you reduce the bias but increase the variance. Conversely, as you decrease the complexity of your model, such as simplifying the features or parameters, you increase the bias but reduce the variance.

There is no such thing as a free lunch when scaling up models. The more a model can generalize to new data, the more flexibility it has to generate outlier predictions, which is necessary to accurately predict those outliers, but then allows for non outliers to get skewed by the increased range of predictions.

3 How to measure the tradeoff?

One way to measure the tradeoff between bias and variance is to use the mean squared error (MSE) as a metric of your model's performance. The MSE is the average of the squared differences between your model's predictions and the true values of the target variable. The MSE can be decomposed into three components: the bias squared, the variance, and the irreducible error. The irreducible error is the error that cannot be reduced by any model, such as the inherent randomness or noise in the data. The goal of statistical learning is to minimize the MSE by finding the optimal balance between bias and variance.

Another way to visualize the tradeoff between bias and variance is to use a learning curve, which plots the MSE against the size of the training data or the complexity of the model. A typical learning curve shows that as the size of the training data increases, the MSE of the training set increases while the MSE of the test set decreases. This means that the model learns from more data and reduces the variance, but also increases the bias. As the complexity of the model increases, the MSE of the training set decreases while the MSE of the test set increases. This means that the model fits the data better and reduces the bias, but also increases the variance.

5 How to reduce the tradeoff?

There are several techniques that can help you reduce the tradeoff between bias and variance and improve your model performance. Cross-validation is a method of splitting your data into multiple subsets and using some of them for training and some of them for testing, which can help you avoid overfitting or underfitting. Regularization is a method of adding a penalty term to your model's objective function that reduces the magnitude of the model's parameters, preventing it from becoming too complex and reducing variance.
