What are the best ways to manage noisy data for machine learning models?

In my perspective first use outlier detection techniques like IQR but if data is of high dimensional then techniques like LOF can be used too as sometimes a point may be an outlier in 2 dimension but it may not be an outlier in higher dimension. Also one can apply clustering algorithms to see whether a point is a noise or not. If data is based on time then time series knowledge can be applied to detect noisy points. Most importantly domain knowledge and constant work with stakeholders also adds to further clean noisy data.

To manage noisy data for machine learning models: 1. Remove or filter noisy data 2. Collect more data 3. Use feature engineering 4. Use Simple Algorithms: Decision Trees or Rule-Based Models 5. Regularize model coefficients 6. Incorporate multiple models in ensembling technique These methods help to reduce the impact of noise on the model, ensuring more accurate and reliable predictions.

To illustrate what noisy data is, think of yourself as a data scientist trying to predict housing prices or credit card fraud prediction Your data is noisy if: 1. It contains inaccurate information. 2. There are missing values especially if these missing values are key factors in predicting your label. 3. It contains outliers, outliers are out-of-range data points and if not handled can hurt your model 4. Information that doesn't contribute positively to your model. Sometimes your dataset can contain columns that will be redundant to your model if not taken care of before building the model it can lead to overfitting or underfitting and this will most likely render your model useless

Irrelevant information: Information that is not relevant to the task at hand and can mask the true signal.

Two major types of noise include: 1. Class noise which can also be called Label noise 2. Attributes noise which can also be called Features noise. Class noise occurs when there's a case of mislabeling i.e the actual class of an instance (e.g, churn vs. not churn ) doesn't correspond to the label assigned either during data collection or data processing Attributes noise includes outliers, missing values, highly correlated features, borderline cases, irrelevant features e.t.c

There are three fundamental types of errors in the information generation process. Those associated with measurement errors, intrinsic disturbances of the population and the low variability of the data. In estimation processes, this has costs in the efficiency of a model, mainly in the instability of the estimator and with it, the respective Maching Learning algorithms.

Also visualization techniques can be use to identify noisy data e.g. using msno plot to check for missing values, boxplots can be use to detect outliers e.t c

One preprocessing method that I have used to reduce noise within a dataset is Principal Component Projection. Assuming your signal lives in a relatively low dimensional space and there is a noticeable difference between the strength of the signal and noise, this technique can be used to reduce noise while keeping the signal intact. In practice, you can compute the singular value decomposition of a matrix and plot a histogram of the singular values to identify the gap between signal and noise. Then by keeping the top singular values and zeroing out the remaining values, the recomposed matrix will be a cleaned version of the starting matrix A.

One of the good ways to identify and reduce noisy data is to use unsupervised learning. If the noisy data has a particular pattern and are similar in certain aspects. The clustering algorithms will form clusters such that the noise becomes part of unique cluster(s) and can be discarded or treated differently as per the use case.

Evaluation tools, akin to a performance review, measure how well your model plays the tune. It's a symphony of techniques ensuring your model sings beautifully despite the noise.

One thing I have found helpful in my Data Science journey to deal with null values is the method of Smart Imputation. In General, we impute the null values with mean .If the data is skewed or there is outliers in the variable then we can compute the medians. But rather than imputing it with generalised measures of central Tendency we can replace it with category specific measures. Suppose , for example, there is null values in the Height column in a student dataset and the Gender column is available. In this case we can replace the null heights of Girls with their mean height and for boys we can impute it with male's mean height. I think this procedure is more useful and can give you better results in ML modelling.
