Model-Based models are widely used in Reinforcement Learning. In this Model-Based Machine Learning (MBML) we try to generate a custom solution for each new challenge using a model. When use a foundation model to train with our data to solve a specific problem, is a good example of a Model Based ML and widely used in Generative AI field. We use models to generate a specific solution for our problems in medical, finance and other industries leveraging Model-based models.

Hybrid models encapsulate the strengths of both, addressing their individual weaknesses. Model-based: Examples: Finance predictive analytics; Autonomous vehicles. Limitations: Data quality dependence; High computational needs. Rule-based: Examples: Regulatory compliance; Basic chatbots. Limitations: Struggles scaling; Rigidity in changing scenarios. Hybrid Models: Strength: Merges adaptability with transparency. Challenge: Efficient integration of both model types.

In my opinion, top 3 things to consider before blindly using model-based models: 1. Ethics: Model-based model can simply put an iron-cast on previously existing biases in society. Without human intervention, these biases will not only not go away, but elevate to such a subconscious level that is will be hard to come back from it. 2. Regulatory/other Checks: Especially in the field of Finance it is important to know what is going on behind the scenes and the logic being used. The problem with model-based technique is there is kind of a black box where the logic in concerned. 3. In case of even a slight change in context or external factors, model-based models can go haywire. Human expertise is of immense importance here.

Cross-validation of both model approaches helps test these models beyond accuracy for efficiency. I would prefer model-based over rule-based models because of flexibility. Rule-based models are rigid and do not give the freedom to modify a large chunk of the model whereas model-based allows that.

Compare the models to each other. Compare the performance of the model-based and rule-based models on the same test set. This will help you to determine which approach is better suited for the specific problem.
