How do you evaluate classification models for data analysis?

Imagine you have a machine that can tell if a picture is of a mouse or a rat. You show the machine 100 pictures, and it correctly identifies 90 of them. That's pretty good! But how can you know if it's really good? That's where a confusion matrix comes in. A confusion matrix is a table that shows how many times the machine correctly identified a picture, and how many times it didn't. That's really the entire principle of it, but of course, it also helps you identify specific areas where the machine is performing poorly.

A confusion matrix provides valuable perspective on the trade-offs between different evaluation metrics. For instance, while overall accuracy gives a general measure of the model's correctness, it might not capture specific challenges like class imbalances. The matrix allows you to delve deeper into the model's performance, highlighting areas where it excels and areas where improvements may be needed. By examining false positives and false negatives, you gain insights into the types of errors the model is prone to, aiding in fine-tuning and optimizing its predictive capabilities.

Models with 70℅ accuracy is generally better than over/under fitting model. However, accuracy is also dependent on the sample quality. Hence, ensuring that samples are equally divided without too much deviation will be helpful. Else, you will end up choosing the wrong classification model.

In situations where misclassifying certain instances incurs higher costs or has more significant implications, these metrics may not provide a comprehensive assessment of the model's utility. Let's say that a fraud transaction happens 1% of the time. If a model merely says that no transactions are fraud, it will get it right 99% of the time and therefore will be 99% accurate. It's important to ask for evaluation metrics to be presented in comparison to reasonable baseline approaches. Perhaps you have a simple heuristics that you can use to identify likely fraud transactions -- run the same evaluation process on these other approaches to put your evaluation into proper perspective.

F1-Score: Imagine a system detecting spam emails. Precision measures how many emails labelled as spam are actually spam, while recall gauges how many true spam emails are identified correctly. In other words, precision is about how often you're right when you say something will happen and recall is about how good you are at catching all the times that something does happen. F1 Score harmonizes these aspects – a high score signifies a good balance. ROC Curve: Suppose your system can vary in strictness. A strict system might overlook spam but hardly mislabels genuine emails. A lenient one may catch all spam but often flags non-spam emails incorrectly. ROC curve illustrates this trade-off—the closer to a right angle, the better the system.

Kappa statistic and Cohen's kappa are metrics that consider chance agreement when evaluating classification models or raters. Kappa is the ratio of observed to expected accuracy, while Cohen's kappa standardizes it (-1 to 1). Picking evaluation metrics that are closer to the business needs for the system will help you to optimize the behavior to align with your objectives. At the same time, it can be good to examine some other holistic evaluation metrics so that the model is likely to perform ok if your business objectives shift.

In classification, never ever rely on Accuracy, as much tempting it is, it could be very misleading. Always check for Data Imbalance as it is very important for Metric evaluation. For Balanced Datasets, always go for Accuracy along with Confusion Matrix and AUC ROC curve, and there can be few situations where we might prefer Recall over Precision and vice-versa. For Imbalanced Datasets, go for Precision, Recall and PR-ROC curve.
