How do you ensure quality data storage and processing?

Success in projects often hinges on apt data storage choices. Continuous re-evaluation is key. A startup might start with a relational database but later shift to a data lake as data evolves. Integration capabilities are vital. With diverse data sources today, a system must support seamless integrations. I've underscored the importance of hands-on experience with various storage systems in my teachings. Theoretical solutions can falter in real-world scenarios. Hence, prototyping and collaboration between data engineers and scientists are essential for balanced decisions.

Quality data storage and processing can be ensured by: Reliable Storage: Use redundant, fault-tolerant storage systems to prevent data loss. Data Validation: Implement strict data validation to filter out erroneous or incomplete data. Data Cleaning: Regularly clean and preprocess data to remove outliers and inconsistencies. Data Security: Employ encryption, access controls, and monitoring to protect sensitive data. Backups: Regularly back up data to prevent loss due to hardware failures or data corruption. Efficient Processing: Optimize data processing algorithms for speed and resource utilization. Monitoring: Continuously monitor data pipelines for errors and performance issues.

Start by thinking about your use case and the type of data you are working with. If you are working with unstructured data it makes sense to work with a file-based data lake and a cleaning pipeline which gradually refines your data from raw data to curated data. Next, think about the frequency and scalability of access. How many people need to access the data and how often? For example, if you have a small team building data dashboards for analytics and reporting and they only update the data weekly it makes sense to use a file-based cloud storage (AWS, Azure, Google Cloud) and an SQL analytics tool combined with a dashboard service to create the reports. Here choices could be Athena or Synapse Analytics on the cloud.

It is important that you define requirements, collect data accurately, choose appropriate storage solutions while prioritizing data security. Then implement data quality checks and robust monitoring systems. Follow this by establishing governance, conducting regular audits and providing training for employees. Finally, focus on scalability and performance optimization to adapt to changing data needs.

Quality checks should be cyclic in nature. Once you have the processes implemented to validate, verify, etc. your data, you should do the same again. The cyclic nature helps in maintaining the checks up to high standards. Especially when there are multiple streams of data, this is quite helpful in my opinion.

Descriptive analysis of the data should be used, but more importantly trend analysis, forecasting, ML techniques can be applied to previous data to utilize preemptive measures against possible bad new data quality.

Also, you can normalize or scale features as needed, convert categorical data into numerical format by using one hot encoding or label encoding, create new features or transform existing ones, continuosly monitor data quality, test the preprocessing pipeline and define performance metrics for your data preprocessing pipeline.

The utilization of pandas for handling csv or xlsx files in the forecasting process has demonstrated potential time inefficiencies, resulting in a deceleration of our forecasting procedure.
