1 What is reinforcement learning?

4 What are the challenges of reinforcement learning?

Reinforcement learning also has some limitations and challenges that need to be addressed. One of them is the trade-off between exploration and exploitation, which is the dilemma of whether to try new actions or stick to the best-known ones. Exploration can lead to better long-term results, but also to more risk and uncertainty. Exploitation can lead to more immediate rewards, but also to less learning and improvement. Finding the right balance between exploration and exploitation is crucial for effective reinforcement learning.

Another challenge is the delayed and sparse rewards, which means that the agent may not receive immediate or frequent feedback for its actions. This can make it hard for the agent to associate its actions with their outcomes, and to evaluate its performance. To overcome this challenge, the agent needs to use techniques such as discounting, which gives more weight to near-term rewards, or bootstrapping, which estimates the future value of each state based on the current policy.

A third challenge is the scalability and complexity of reinforcement learning, which means that the agent may face a large and diverse set of states and actions, and a high-dimensional and noisy environment. This can make it difficult for the agent to learn and store its policy, and to generalize its knowledge to new situations. A major challenge with RL is the difficulty in training the model. RL algorithms have been notorious because their training can be very unstable where the loss can jump all over the place. This might be largely due to the large action and state space as well as very sparse rewards.
