In my opinion and experience data science can be effectively learned when you play around with data using statistics, mathematics, and coding. This also includes some crucial preliminary steps such as EDA (Exploratory Data Analysis), data preprocessing and munging, data transformation, and trying to learn from the ground up and then make it a pipeline where tasks are usually automated later.

The best way to do this is to do an end-to-end project of your own, all the way from idea conception to a product of some kind. This means framing the problem, collecting your own data, processing it, running experiments and modeling. Throw in an app and or a way to serve your model, bonus points for maintaining and monitoring and improving it. This will give you a full taste of what it feels like to do DS/ML in the wild without any of the crutches you might encounter in courses or competitions.

Many data scientists miss a crucial pillar in their journey, which is statistics and maths. I think we should not underestimate their power before we start coding. It is not about the code. Codes are available online for everyone. Data scientists should learn what is behind the code to choose the algorithms effectively in the correct application.
