How can you enhance the accuracy of your predictive models?

Once in my fellowship program, I was assigned to create a predictive model for a car dataset to identify its future profit growth. And after I preprocessed the given data and utilized some algorithms, I didn't get the expected accuracy results for my model to predict future trends. And upon discussion with my mentors, I understood that the following things help us enhance our predictive models: -> Importance of Data Quality -> Consideration of Outliers and Missing Values -> Trial and Error Continuous Learning -> Appropriate Algorithm selection -> Feature Engineering -> Fine tuning

The saying "garbage in, garbage out" rings especially true in predictive modeling. To build an accurate model, you need top-notch data. Start by thoroughly cleaning your dataset to weed out any inaccuracies or inconsistencies. This means dealing with missing values, fixing errors, and standardizing data to prevent outliers or noise from throwing off your model. In addition, choosing the right features is key. Focus on identifying and using variables that have the biggest impact on the outcome you're predicting. By prioritizing data quality and selecting the most relevant features, you lay a solid foundation for a predictive model that delivers reliable results.

The more you sweat in peace the less you bleed in war. For building a predictive model data cleaning is one of the sweating tasks that needs to be done meticulously to avoid the bleed (Inaccuracy) of Predictive Model.

Standard data quality is the foundation for building high accuracy and performance model. Data cleaning methods such as handling of missing values, removing of duplicates and pre-processing techniques like standard scaling and 'one hot encoding' are essential to setting data transformers. It is also important to identify and use the right target for the predicted outcome.

Improving model accuracy hinges on the quality of the underlying data. Practices like data cleaning, consistency checks, addressing imbalanced datasets, preprocessing, and robust data governance collectively contribute to data quality enhancement. Select the most suitable one for your problem. For instance, if we have data with more dimensions and a lesser number of records then a Support Vector Machine can be a good choice.

With a plethora of algorithms at your disposal, choosing the right one for your problem is half the battle. While the default configuration of a model is okay most of the time, there are some cases where you need to tune the hyperparameters in order to further improve the model's performance. Trying out these values manually isn't effective. Thankfully, you can use techniques such as GridSearchCV to help you choose the best hyperparameters for the model based on your data. With this technique, you can propose a range of values for certain hyperparameters. Then, the best value will be chosen automatically by iterating through combinations of hyperparameter values. After that, evaluate the model to see if there are changes in performance and adjust if needed.

Fine-tuning the hyperparameters of your chosen algorithms can significantly impact model performance. Techniques like grid search, random search, or Bayesian optimization can help you find the optimal combination of hyperparameters for improved accuracy.

Some advancement in this area is Automated retraining pipelines (streamlining the process of retraining models) and Explainable AI for continuous learning.

In a project at Vector Institute, we developed an NLP model for healthcare data analysis, aiming to classify patient feedback accurately. To enhance the model's capability, we implemented a continuous learning mechanism, specifically a feedback loop, where healthcare professionals periodically reviewed the model predictions. Their corrections and annotations were then used to retrain the model, enhancing its understanding of nuanced language and clinical terminology. An important issue to consider in classification models is class imbalance, which simply means that one class is present in a higher frequency than other classes. If not addressed properly, this can greatly impact the model accuracy. Try techniques such as resampling, cross validation, or clustering the abundant class.

Amount of data needed - To drive any statistical significance between groups one needs certain number of points within each group. For only two classes and a univariate distribution, the number of data points can be determined using power analysis. In case of multivariate problems (e.g. Multi class distribution with multiple variables), things get more complicate to determine. The only one to test it is by running ML algorithms by sequentially increasing the side of data and test their performance. This however, only holds true when one has access to enough data. Another way certainly can be to use synthetic data these days.

Proper validation techniques, such as cross-validation, and thorough testing on unseen data are crucial for accurately assessing model performance. Overfitting to the training data can lead to poor generalization on new data, so it's essential to validate model performance on independent datasets.
