Your team is stuck with an inefficient algorithm. How do you steer them towards a more effective solution?

First, we need to understand what does the "inefficiency" mean in the context being looked at. Say, is it one or more of: - Low throughput (under what conditions?) - High memory consumption - CPU spikes under certain conditions - excessive IO reads/writes (say over the network, disks) Collect data and Drill down: Take thread dumps, Memory dumps. You may need to do it iteratively, and drill down deeper towards the source of the problem. The goal is to identify the problem; often it's more than one problems. Work on a plan, evaluate tradeoffs: It should be based on the scenarios that trigger the problem. Sometimes none of the traded options seem viable. Under such situations, put constraints on the inputs to eliminate such scenarios.

As someone experienced in full-stack development and machine learning, my approach to addressing an inefficient algorithm begins with thorough analysis. You must have automated builds with performance and regression tests that unequivocally identify performance bottlenecks. This extends to real-life scenarios, meaning you must also instrument applications or services with performance metrics that identify bottlenecks. Observability and monitoring data will drive our actions and allow us to focus on "why" and not "how" we modify specific solutions and algorithms.

This is where life imitates art. Think of this real-life episode of doing a coding interview. You start with a working brute force algorithm. Then, you explain that it will not scale. You replace it with a better solution by adding caching or dictionary lookups. Eventually, you end up with a dynamic programming solution. Use LLMs to experiment with different solutions. Run the regression tests, document the results, and propose the final solution in a design document capturing all your findings.

Using the code profiling tools and performance tests with requisite load, we would be able to have data around why the algorithm is performing inefficiently. We can then make a list of tasks which can help us improve the performance of the algorithm. It is completely plausible that the algorithm performs inefficiently because the network call takes longer to complete and a simple caching of the data helps improve the performance of the algorithm by say 50%. So making a list of tasks which will help improve the algorithm performance will give us a birds eye view on which optimizations to prioritize in interest of time and which optimizations will give us the maximum benefit.

Problems can be solved via various approaches, some more efficient than others. At a previous position I noticed that a problem being solved was using a hacky method that solved the problem, but was not efficient. I noticed that there was a more natural way to approach the problem using linear programming To propose an alternative I first wrote out the linear program in latex and what the objection function and constraints would be. I came up with example data of the problem at hand and showed how my POC implementation was performing and how it had benefits over the current approach, both computationally but also from a stakeholder perspective. I believe showing both results and theory compared to current approach is best.

The trade offs are important to consider when putting in the necessary optimizations to the inefficient algorithm. Not all optimizations can directly help improve the performance of the algorithm. Some optimizations could increase the algorithm performance but degrade the functionality if not tested and validated properly. Certain optimizations could introduce some other bottleneck in the performance of the algorithm. So it it is imperative to slow down and think if a given optimization will actually benefit the performance while maintaining the functionality of the algorithm and doesn't introduce another bottleneck in the system.

I focus on fostering collaboration when faced with an inefficient algorithm. I encourage my team to analyze the problem holistically, weighing theoretical improvements against real-world constraints such as system integration, scalability, and team familiarity with the new approach. By promoting open discussions, code reviews, and hands-on experimentation, I ensure we balance algorithmic efficiency with practicality, ultimately guiding the team toward a solution that maximizes both performance and feasibility. The key is maintaining flexibility while driving innovation.

When a solution seems to work intuitively, also seeks its formal proof, this will ensure that you are not shooting from the hip and correcting for edge cases later. A formal proof also helps you derive corresponding test cases which you should add to the implementation. Also check that your implementation is using the correct data structures provided by the language's standard library or other libraries. Each underlying implementation has a significant impact on the performance.

Testing the performance optimizations to improve algorithm is tricky for couple of reasons:- A. The performance of algorithm should hopefully improve and no new performance bottlenecks should be introduced. B. The functionality of the algorithm shouldn't change. B is easy to validate using the unit and integration tests. A is harder to validate as the system metrics such as run time and memory footprint might differ a lot across multiple runs of the performance tests. One way to make sure that optimizations have actually improved the performance is to run performance tests multiple times and compare the statistical metrics like mean or median. Performance tests are much harder to automate as they result in flaky assertion criteria.

Given my background in full-stack development, machine learning, and experience as a Teaching Assistant, I would approach the challenge with a data-driven mindset. I would first analyze the bottlenecks of the current algorithm, then lead a collaborative brainstorming session to explore alternative approaches. If you are deploying a client application, consider investing in collecting remote telemetry (with user's consent only!). Similarly on servers most metric frameworks can collect metrics around any code boundaries. If these are not possible you can simulate user actions in a test environment and measure real world effects yourself. If your changes improve performance you have data to celebrate about. If the performance improvement is not as good you can investigate further. It could be assumptions you made about data, dependencies or your implementation. In any case measure what you run.
