What steps can you take to align your machine learning project with business goals?

Find out the business objective ie. what is the company trying to gain? How will the company use the model? Are we trying to predict something? Who is the audience? What is the current solution? This will determine how you frame the problem and what models you select such as training supervision models (supervised, unsupervised, reinforcement learning etc.). Next it's important to evaluate the models with a performance measure ie. if you are predicting something usually you would use regression (or classification) to do so and in that case, a typical regression performance measure would be RMSE. During the whole process, you would want to check what exactly you are assuming and verifying that they are correct assumptions that can be made.

Typically, organizations are able to align on big-picture goals. The business users may define a goal such as: 1. Discover customer behavioral trends that will predict future purchases 2. Automate the order-to-fulfillment process 3. Extract a subset of product use cases for immediate customer service interactions 4. Predict worker absenteeism to improve scheduling

Make sure you framed the problem correctly early on before you get into the pit. Here are few ways to pin the problem Start by crystalizing the business problem you aim to solve. What's the core objective, and who benefits? Pinpoint the people affected by the issue. Take a good look at how things are right now. What's working, what's not? It's like diagnosing a patient before prescribing a remedy. Envision the ideal outcome. What does success look like? Make it tangible, measurable How will you know your solution is making a real impact? Address assumptions, risks, and constraints upfront. Define the project scope. What's in, what's out? then you begin to choose your machine learning gear.

We have to first examine whether the data we need matches the needs of our business and is volatile or not as when data changes in real time deployment then the machine learning solution gives out alot of noise.

Garbage in, garbage out: you need to understand the data (this means getting domain knowledge) in order to make sense of it and clean it effectively.

Identify and acquire relevant data sources aligned with the problem definition. Assess data quality, completeness, and potential biases that may impact model performance and business outcomes. For example, Customer demographics, transaction history. Assess data quality, identify missing values, outliers and understand potential biases in the data. Also understand the ethical and legal implications of data privacy.

Understanding the data is a critical phase in a machine learning project. It involves assessing the relevance, reliability, and representativeness of the data available for the problem at hand. Exploration, cleaning, and preprocessing steps are essential to ensure data suitability for machine learning. This process includes conducting descriptive and inferential statistics, visualizing data distributions, and addressing missing values, outliers, and anomalies. Additionally, awareness of the ethical and legal implications of using and sharing the data is crucial. By thoroughly understanding the data, practitioners can make informed decisions about feature selection, model training, and validation.

You want to check that your data is relevant, representative, and reliable for the problem statement. It's essential to clear. Many a times, you'd be required to create a robust understanding around missing data, and also address anomalies. Do check for legal and ethical implications.

There are books on analysing data properly. The most important point is to understand what the collected data express. How was it conceived and does it serve your purpose well. You have to understand that machine learning, prediction models etc. is only valuable when the future resembles the situation from which model/learning data was collected. This only means that you have to use the data in a way that also applies for future scenarios and not just assume that deep learning models always works.

In my experience, sometimes people are so excited at the thought of certain models or just using AI in general that they lose sight of problem at hand. Sometimes, the AI and algorithms are definitely needed and make sense. But other times, a simpler analysis might actually produce the answer to the business problem. I think going into the business problem looking for a solution (and with an open mind) instead of going into the business problem "knowing" that you want AI is an important key to aligning data problems with goals.

Construct an effective machine learning model by carefully choose an algorithm and architecture that align with your specific tasks around clustering, regression or classification. Bifurcate the dataset for different uses. Cross validate and regularize to counteract overfitting or underfitting. Libraries like scikit-learn, TensorFlow, or PyTorch maybe very useful. This process is iterative, requiring continuous refinement and tuning of models and parameters. Ensure strong documentation and version control to maintain a clear project trajectory and reproducibility.

Choose appropriate algorithms based on the nature of the problem and data. Optimize model parameters to enhance performance and interpretability. Consider scalability and efficiency in model development. For example, use a predictive algorithm like Random Forest to predict churn. Optimize hyperparameters for better accuracy and interpretability. Apply cross-validation, regularization, and other techniques to avoid overfitting or underfitting.

When choosing and building the model it is always helpful to keep the Pareto principle (80/20) in mind. Starting with a simpler model that will get you to 80% of the expected impact in 20% of the time allows you to produce and evaluate results quickly and also verify your business hypothesis. This means choosing the core features and functionalities of your model upfront, but also defining what additional features and functionalities can be added later in the process to further improve the model. By applying this approach, the initial base model can also always be used as a reference for all other future models and reasons for performance changes can be identified easily.

Simplest example of machine learning model alignment with business goals would be the "calibration". Most of the popular statistical models do not produce "real" probability values. Therefore, for the businesses where the actual probabilities of outcomes is important, you need to perform model calibration.

Evaluating the model is a crucial step in assessing its performance on both the test set and new data. Selection of appropriate evaluation metrics, such as accuracy, precision, recall, F1-score, ROC curve, or others, is essential and depends on the specific machine learning task and business goals. Comparing the model with baseline or benchmark models provides context, and analyzing errors, biases, and uncertainties contributes to understanding model limitations. Additionally, considerations of interpretability, explainability, and fairness are vital, as they influence stakeholder trust and satisfaction.

I am adamant about evaluating and interpreting the model in the context of the problem. Consider the following hypothetical example: You are trying to predict whether or not someone has cancer. Your model has a relatively low overall accuracy rate (say 80%), but it is because there is a high false-positive rate. In other words, your model is not very accurate since it has a tendency to "detect" cancer in the patients who don't actually have cancer. Yet, the model has a very low false-negative rate, meaning that it accurately detects cancer in patients with cancer. Wouldn't you be okay with a model that has a lower overall accuracy, as long as it is accurately detecting the cancer in patients with cancer?

Assess model performance using relevant metrics tied to business objectives. Validate the model with holdout datasets or cross-validation techniques. Interpret results in the context of business impact and adjust as needed. For example, assess model accuracy, precision, recall, F1-score, ROC curve etc. Validate performance on a holdout dataset to ensure generalizability to unseen data. Compare the model with baseline or benchmark models and consider the interpretability, explainability, and fairness of the model.

Understand the problem and what you want to be able to do. Test the model under the right circumstances and by using an appropriate method to actually validate the model - a poorly (incorrectly) validated model may actually not work as it was supposed to.

If you work in a highly regulated industry, make sure to have the model validated, according to internal company procedures, or if possible a third party company specializing in vallidation.

Remember real model deployment often takes months. This is a necessary step to make sure early stage results are fit for "prime time". I like to think of three phases, code I write to 1. convince myself, 2. convince my peers, 3. works in production. For every ten pieces of code I generate to explore an opportunity, only 5 may make it to my trying to convince others. Of those 5 ideas only 1 idea will make it to production.

Deploying the model into production marks the fifth step, transitioning it from development to practical use by customers, clients, or users. This phase involves ensuring the model's scalability, robustness, security, and maintainability, allowing it to handle real-world data and scenarios effectively. Implement the model into production, considering scalability, real-time processing, and integration with existing systems. Collaborate with IT and operations teams to ensure a smooth deployment process. Monitor model performance in a production environment and implement updates as necessary. For example, implement a churn prediction model into the customer relationship management system, ensuring it seamlessly integrates with existing processes.

Deploying a machine learning model to production requires focusing on scalability, robustness, security, and maintainability. Key considerations include load handling, data variability, security measures, and maintaining model performance post-deployment. Tools like containerization, MLOps platforms, and cloud services are vital for successful deployment. Start strong, collaborate across teams, and prioritize continuous iterations for effective model deployment.

At the end of the day, communicating is all about storytelling. The key element in effective storytelling is making sure to hit on the "so what?". You built this amazing model, "so what?". To answer this question, you have to know your audience and what they care about. Start with the value proposition - this is the most important piece to convey. Without a clear value prop, you may loose your audience. Once they are engaged, you can then move on to the assumptions taken and how the model works.

You want to check who your audience is. In accordance with the audience, you present the solutions and outcomes as business solution or engineering solution. Ensure that your communication is clear, simple, the metrics used are uniform and there is very little jargon. Use simple visuals for your data. Also convey the limitations of the research when you present your final recommendations and potential next steps.

The most valuable advice I received was to structure my storying telling in the follow three steps. 1. This is what we saw: These are the empirical/numerical results. 2. This is what that means: F1 Scores, Recall, etc, break it down so its easy to digest. 3. And that Implies: What can we do with the information you've just presented? Often young professionals are wrapped up in explaining the details and never make it to step 2, much less step 3. You can chain together a long sequences from such a process, and its easy for people to follow along.

This will facilitate a deeper understanding of the core business needs, and help in refining data selection, and model reconstruction. In essence, it underscores the continual importance of maintaining a focus on business comprehension and reassessment of the entire process from data acquisition to deployment.
