1 Choosing the right penalty

One of the first decisions you need to make when using regularization is which penalty to use: L1 or L2. L1 penalty, also known as lasso, tends to shrink some coefficients to zero, resulting in a sparse model that can reduce the dimensionality of the feature space. L2 penalty, also known as ridge, tends to shrink all coefficients by the same amount, resulting in a more stable model that can handle multicollinearity. However, neither penalty is universally better than the other, and the choice depends on the characteristics of your data and the goal of your analysis. For example, if you have many irrelevant or redundant features, L1 penalty might be more suitable, as it can eliminate them and improve interpretability. On the other hand, if you have highly correlated features, L2 penalty might be more suitable, as it can reduce the variance and improve prediction accuracy.

There are several other issues related lasso (L1) regularisations: - Selection Bias: Lasso regularization can lead to biased estimates of the regression coefficients if the variables are correlated. In such cases, the Lasso penalty can choose one variable over the other, which may not be the true causal variable. - Instability: Lasso regularization is known to have instability issues, meaning that small changes in the data or the model can lead to significant changes in the selected variables. - Computational complexity: The Lasso regularization can be computationally expensive to solve, particularly for large datasets. This can be problematic in situations where fast model training is important.

From a conceptual viewpoint, it is perhaps helpful to think of regularization as a way of "focusing" the space of functions to the subspace (or subset) "most appropriate" for the task at hand. The notion of "most appropriate" is task specific and is often driven by various considerations including a priori knowledge the engineer wishes to include, the cost and efficiency of computation, and robustness.

In logistic regression, you can use different types of penalties like L1 or L2 to add regularization. Picking the wrong one can mess things up. For example, L1 can make some feature weights zero and remove them, which might not be what you want. 2 Tuning the regularization parameter

Another decision you need to make when using regularization is how much to penalize the coefficients: this is controlled by the regularization parameter, usually denoted by lambda or alpha. The higher the parameter, the more the coefficients are shrunk, and the lower the parameter, the less the coefficients are shrunk. However, there is no simple formula to determine the optimal value of the parameter, and it requires trial and error and cross-validation to find the best trade-off between bias and variance. If the parameter is too high, the model might become underfitted and miss important patterns in the data. If the parameter is too low, the model might become overfitted and capture noise in the data.

The strength of the penalty is controlled by a parameter, often called λ or C. Finding the best value requires testing multiple options, which can take a lot of time and effort. Pick too high a value, and your model could miss important stuff (underfit). Pick too low, and it might memorize the data but fail on new examples (overfit).

3 Scaling the features

A common mistake that can affect the performance of regularization is not scaling the features before applying the penalty. Scaling means transforming the features to have a similar range of values, usually between 0 and 1 or -1 and 1. This is important because regularization assumes that all features have the same impact on the outcome, and penalizes them equally. However, if some features have much larger or smaller values than others, they will be penalized more or less, respectively, and distort the model. Therefore, it is advisable to scale the features before fitting a regularized logistic regression model, using methods such as standardization, normalization, or min-max scaling.

4 Dealing with categorical features

Another challenge that can arise when using regularization is how to handle categorical features, such as gender, color, or country. Categorical features are usually encoded as dummy variables, which are binary indicators of the presence or absence of a category. However, this can create problems for regularization, as it can introduce multicollinearity and increase the dimensionality of the feature space. One way to avoid this is to use one-hot encoding, which creates one dummy variable for each category, except for the reference category, which is dropped. This can reduce the correlation among the dummy variables and the number of features. Another way to avoid this is to use contrast coding, which creates one dummy variable for each category, but assigns different values to them, such as -1, 0, or 1. This can capture the effect of each category relative to the reference category and reduce the penalty.

If we have different kinds of categorical variables, not necessarily dichotomous kinds of variables. We can use Jaccardian Index formula to regularize data. But if we have only continous data, we should use Eculidean formula to regularize data.

5 Evaluating the model

The final pitfall that can affect the use of regularization is how to evaluate the model and compare it with other models. Regularization can improve the model fit and reduce the overfitting, but it can also reduce the model accuracy and increase the underfitting. Therefore, it is not enough to rely on metrics such as R-squared or accuracy to judge the model performance, as they can be misleading and biased. Instead, it is better to use metrics such as adjusted R-squared, AIC, BIC, or cross-validation score, which take into account the complexity and parsimony of the model.
