What are the most useful Pandas functions for data cleaning in ML?

In my experience of Pandas for machine learning data cleaning, the dropna() function stands out as a versatile tool. There is an often-overlooked feature within it called the 'thresh' parameter. By setting a threshold, like 2, you gain precise control over the processing of rows based on their non-null values. Rows falling below this threshold (including the threshold) get dropped, thereby letting you curate your dataset's completeness to match your analysis needs. This nuanced feature not only adds a layer of refinement but also provides a valuable means of handling missing data with precision, ensuring your dataset meets the exact specifications of your machine learning endeavors.

By default, Pandas will drop rows containing the target (NA) values. You can also use df.dropna(subset = [list of column names]) to only drop rows where NAs appear in the desired target columns. This can be useful if some variables cannot be imputed and you need to remove those NAs.

During the process of data cleaning you will meet with missing values and you want to fill them with appropriate values so that this doesn't affect the efficiency of the model. The most widely used method is to fill the missing values with mean value but in few cases the median value is used to fill in N/A rows. This process can be effectively done using the Pandas library which supports various data cleaning and data processing functions. If the number of rows missing is less and the data is large then it is suggested to drop those rows. But when the number of missing rows is high but the data is not comparatively much then it's preferred to fill them with mean value or median value based on the context of the data and problem.

There are various methods to fill missing values in a DataFrame. Here the one's that I used the most: - Fill missing values with the mean, median, or mode of the column. - Fill missing values based on the values of their nearest neighbors in feature space. - Fill missing values with the previous (forward fill) or next (backward fill) non-missing value in the column. - Interpolate missing values based on a linear relationship between known data points. The choice of method depends on the nature of the data, the pattern of missing values, and the specific requirements of the analysis.

Whereas fillna() is very handy in Pandas, keep in mind that filling missing values with a constant (mean, median, 0, etc.) can be a very poor choice. You can supply a method, such as a lambda function which implements a more robust computation of replacements.

To fill missing values in Pandas, use these methods: * Constant Value: df.fillna(value) for a specified constant. Simple but may skew data. * Mean/Median/Mode: Replace with mean (df.fillna(df.mean())), median, or mode. Common for numerical data. * Forward Fill: df.ffill() carries forward the last non-null value. Handling missing values improves data, but drawbacks include: 1. Introduction of Bias: Filling with summary statistics introduces bias. 2. Loss of Information:Can lead to meaningful insights loss. 3. Impact on Statistical Analysis: Affects analyses, especially if missingness relates to the outcome. 4. Assumption of Homogeneity: Assumes similarity between missing and non-missing values, not always true. 5. Sensitive to Imputation Method: Choice matters; different methods yield varied results, affected by data distribution and missingness nature.

In few cases we are forced to replace few values due to the data error or typos caused during that time it's better to have missing values rather than wrong values like negative age, cost less than 0 etc, either we must replace those values with absolute values using replace function or applying abs() function using the df.c_n.apply(abs) function. In very few cases we will not be aware of the data or errors in spellings of the categorical values in the we will use the replace function.

`replace()` is useful when you know exactly what you are replacing with what. Replacing NaN with some number is a common, straightforward case. But what if you want to do replacement with more complex logic, for example, replacing string with numerical equivalencies, `map()` can come handy, which will allow you to to replace values by mapping them via a dictionary or other function.

Let's say you have a dataset of a small store's inventory. In this data, some items have their price mistakenly entered as -1. Also, in the 'category' column, you have some items labeled as 'frut' instead of 'fruit'. To correct these, you would: Change all -1 prices to NaN, indicating that the real price is unknown: df.replace(-1, np.nan). Correct the typo in the 'category' column, changing 'frut' to 'fruit': df.replace({'category': 'frut'}, {'category': 'fruit'}). This way, you ensure your inventory data is accurate and meaningful, making it easier to manage your store's inventory effectively.

Having proper column names is important, because inconsistent column headers may create confusion. So pandas library has got an amazing function which is df.rename() which has the ability to rename the columns by passing a list or dictionary like old:new column names while we are using lists the column names are taken respectively.

A very useful pattern is df.rename(columns = {'old1' : 'new1', 'old2' : 'new2', ...}, inplace = True). Pandas offers the 'inplace' argument in many methods, and it saves writing the explicit assignment (e.g. df = df.rename(columns = {'old1' : 'new1', 'old2' : 'new2', ...})).

Let's spotlight some lesser-known yet influential functions for data manipulation: agg() and transform(): Beyond simple aggregations, agg() offers complex summary statistics, while transform() excels in element-wise transformations, keeping the DataFrame's shape. explode(): A lifesaver for list-like data in columns, turning each list element into a separate row, simplifying the flattening of nested structures. eval() and query(): These bring SQL-like efficiency into Pandas. eval() performs operations across multiple columns through string expressions, and query() filters dataframes similarly, enhancing code conciseness and performance. These functions can streamline data processing, proving versatility beyond its common uses.

I had a case where I was working with time series, which involved manipulating and analyzing the time-indexed data. I was analyzing the average price of a product in a specific time window to understand the fluctuation in price. I was able to calculate the moving average using Pandas' function `rolling`. Let's say in my dataset stored as a dataframe named `df` I have a column named `price`. I was able to calculate the rolling mean over a 3-day window by a single line of code `df['price'].rolling(window=3).mean()` This is just one of many operations you can perform with time series data using Pandas' rolling() function in combination with other functions to process and analyze the data over specific time intervals.

In Pandas, apply() is versatile for custom data transformations. It allows applying a function to each element in a column using df['col'].apply(func), like a log transformation with np.log. For operations across rows or columns, one can set axis=1 for rows and axis=0 for columns, ideal for multi-column dependencies. Quick, one-time functions can use lambda: df['col'].apply(lambda x: x**2). For conditional changes, one can combine apply() with lambda for logic-based transformations. Also, you can define your own functions for complex tasks. apply() is powerful but may be less efficient for very large datasets; in such cases, one can consider vectorized operations.

There's also df1.join(df2) if the index is shared across the two dataframes, which saves a few parameters instead of using `merge`.

It's easy to make mistakes using concat() and get an unexpected result. First, get in the habit of using axis = <value [0, 1]> in the arguments otherwise you might want to merge columns and instead Pandas stacks them. Another really critical item is that using concat() to merge columns the result will align on the index. If you try to merge, say, a numpy vector and a Pandas dataframe, hoping to make the vector a new column, that won't work correctly. You can either remove the Pandas index (df.reset_index(drop = True, inplace = True)) or convert the numpy vector to a Pandas series and add the index from the DataFrame (if that makes sense).

In Pandas, merging dataframes is key for combining different data sources: * merge(): Use pd.merge(df1, df2, on='col') for SQL-like joins on a common column. Choose from inner, outer, left, or right joins, like merging customer data on a shared ID. * concat(): pd.concat([df1, df2], axis=0 or 1) concatenates vertically (rows) or horizontally (columns). Apart from what has already been mentioned, column normalisation is a very important data cleaning method for any ML task. This ensures that all features are in the same scale and thus loss functions are easier to control. Non normalised features may give large error values and models may not converge. It will also unnecessarily consume more memory and thus one can face out of memory errors.

Data normalization and standardization is the most important factor to consider depending upon distribution of data to make data very reliable and obedient for your model
