This shouldn’t come too early in the process of adopting ML. Don’t overengineer your PoCs and MVPs. There’s plenty of time for that after the business value is visible.

Storing and keeping the most information your can to keep track of data alteration and shifting is really important to keep your system up to date and detect issues that often occurs with time.

In addition to the current response, which is a good list to consider as a default, it’s important to note that very often data drift is measurable immediately when scoring but accuracy can have a substantial lag before the target event occurs in the business, which means leaning on early indicators like data drift are key to guard against being unaware of model accuracy issues in this gap period. Sometimes it’s possible to define a field very similar to the target but has a shorter time window thus can serve as a pseudo target value for analysis and evaluating performance.

To ensure the continued effectiveness of machine learning models, it's crucial to update them as required based on monitoring and evaluation results. Updates might involve retraining models with fresh data, fine-tuning parameters, or even redesigning models with improved features or algorithms. It's essential to document and track these updates, thoroughly test and validate them before deploying them in a production environment.

In your MLOps process, integrate a re-training process that can be triggered on collected data, to fit the new data distribution, based on the previously discussed monitoring results. It will allow your system to keep performing well or even better with time (by completely retraining the models or fine-tuning them).

Model refreshes are sometimes straightforward but sometimes have multiple moving parts. For example, let's say the champion model is degrading but a new data cut that you need to refresh lags behind 3 weeks and currently there aren't enough rows. to refresh. Do you make a temp refresh on a small sample to get by or do you keep the champion model despite clearly trending worse? This isn't the most common example but still I want to propose that a refresh schedule agreed upon that should be feasible to implement and also have a threshold for unexpected issues that occur before the scheduled date. This provides a way to measure "bad" and scheduled refreshes should help keep scoring data closer to training data on a rolling basis.

To ensure the security of your machine learning models and data, it's crucial to take several precautions. This includes encrypting data and models, implementing authentication and authorization mechanisms to control access, and safeguarding against malicious attacks like data poisoning and model stealing. Employing security best practices such as HTTPS, VPN, firewalls, and encryption keys is essential. Tools like AWS KMS, Azure Key Vault, and PySyft can assist in securing models and data.

It costs a lot to store conveniently your data, especially sensitive data. Pay attention to the laws in your country and the countries where your storing occurs, for example GDPR in Europe, to make sure that you respect it. In addition, do not only focus on the data itself, but incorporate the metadata around it to keep a track of the data environment and alteration.

These tools not only make models more helpful they can also give you hints about what other features you may need to improve your model. Shap values are the most common method. For a given prediction it shows you how much each feature pushes the prediction higher or lower.
