A machine learning pipeline can take help of all the levels of skills you might have in the team. For example, beginners aggregating data from varied sources can be the first step where they can contribute, while for someone fluent in Python, data analysis and applying certain transformations to the data before training can be another and for an experienced ML engineer developing the training pipeline for maybe a new model architecture, doing performance benchmarking of the same will be better. That said at each step there are gains with experience on time and cost of infrastructure used. So having that drive to make whatever you do more efficient is highly necessary.

Creating a test set at first which can model your usecase in real life is absolutely the most essential step when dealing with a ML task. This sadly does not directly relates to picking up the test set of open source datasets, because the source of the data might have quite an impact on the output of ML model.

In order to communicate clearly you need to first breakdown the task into smaller and more clear objective tasks. As a senior ML engineer if the importance of data distribution is not communicated to the data aggregator, then you just might have low quality or less diverse data for your training.

Utilizing tools is just essential at all the steps and everyone should have a mindset of utilizing tools to improve their efficiency in all aspects. But mind it, you should be aware of the gains a tool brings to the table and not use tools just for the sake of it. One example of a tool from which I personally moved away is "weights and biases". If your experimental setup requires you to run quite a lot of training iterations, it is a brilliant tool. But as you converge on large-scale training jobs, which will take weeks and months, then for me, a tensorboard suffices.
