What challenges do you face when cleaning data for machine learning?

The presence of missing values in a dataset can significantly harm the performance and precision of machine learning models. Challenges encompass upholding data integrity and reliability. Frequently, missing values are either disregarded or receive insufficient attention, thereby introducing bias into the analysis and model predictions. Additionally, addressing missing values can become computationally demanding, particularly with large datasets. Appropriately managing missing data is pivotal to guaranteeing the resilience and precision of machine learning models.

Inconsistent data formats present challenges when collecting data from diverse sources, like MM/DD/YYYY and DD/MM/YYYY dates. This can be time-consuming and error-prone. Accurate data parsing is crucial for precise machine-learning models. Unchecked inconsistencies lead to errors and hinder data processing. Standardizing formats is essential, ensuring data harmony for accurate machine learning. Establish a standardized data foundation before any data science project. It boosts reliability, insights, and analysis robustness, setting the stage for effective data-driven journeys.

Neglecting outliers and anomalies can significantly impact model training, resulting in models overly sensitive to extreme values. To cultivate robust models, tackling outliers becomes challenging, necessitating techniques like robust regression or clustering. Mitigating these challenges requires a blend of statistical methods, domain knowledge, and thoughtful selection of machine learning algorithms.

Skewed Data are a pain, but it is essential to understand why the data are skewed. Case 1: Data is naturally skewed. In this case, oversampling or under-sampling might be an issue as we remove important information. (What is the prior probability of an answer without any other info) in this case, I would be very careful with my method and prefer a method less influenceable with the number of individuals (e.g. SVM that focuses on the separation zone) and on the loss function (please don't use accuracy here) Case 2: Data is unbalanced due to data collection (e.g. asking the question Do you like surveys?) In this case, I would focus on sampling techniques In each case, the validation should use proper metrics and testing to avoid problems

Data introduces challenges such as model biases and limitations in generalization due to data skewness. Imbalanced datasets can hinder model performance, but strategies like data augmentation, including undersampling the majority class or oversampling the minority class using techniques like SMOTE, can help. Consequently, managing imbalanced and skewed data demands a blend of data preprocessing, algorithm choice, and tailored evaluation methods. Version control is a vital but sometimes underestimated aspect of data science. Dimensionality reduction can enhance visualizations, aiding business users' comprehension. Preventing data leakage, where target variable information seeps into features, is essential to ensure realistic model performance assessments.

The root problem of many problems is a poor data definition and the lack of explanation on how/why data were collected! Bad data definition leads to inconsistent data as everyone has a different understanding. It also leads the analyst to apply the wrong correction (e.g. imputation of missing value where null was not applicable). Also without data collection purpose, it is impossible to check for bias and can lead to wrong intel. Data is great but metadata is also important and should be well defined prior starting to collect it!
