However, there are times when you need to leverage data and insights to come up with new concepts and new ideas, similar to bottoms-up qualitative research. Machine learning is equally helpful at this stage by allowing you to play around with the data and experiment with original models. You may not have clear business goals or a strategy to leverage AI techniques for specific reasons, but you may find yourself on some groundbreaking ideas. Then, you can use more machine-learning models to support your new findings for your upcoming startup!

Few thing I always found useful are: 1. If there is a Gold a standard Model, how will outcomes help. So before u think of model outcomes, think of business outcomes 2. what’s my performance benchmark which should be not just a technical discussion but a CBA(cost benefit analysis) discussion 3. While translating Business objective to analytical objectives always be clear of what the analytical objective will achieve and what it will not achieve

Whenever you consider ML, for any purpose, always start and end with the data. It may be heresy, but you should look at your data even before you know what questions you want to ask. If you have access to a rich data source, you will actually benefit from using various unsupervised methods to understand the data; invariably, you will find that the data suggests questions you might never have considered. You can then use supervised methods to perform the detailed analysis that gives you the answer to those questions. On the other hand, if you don't have access to data, then it doesn't matter how good your idea or how complete your understanding of ML methods; you won't get any useful results. Always start and end with the data.

From my perspective, Machine Learning (ML) stands out as an undeniably powerful tool, yet its effectiveness fundamentally relies on the quality and relevance of the data it processes. human intervention for data source is really critial here; it's pivotal to ensure that the data isn't just abundant but also precise, consistent, and aligned with our specific objectives. When delving into the assessment of data for ML, it transcends mere quantity; the cleanliness and consistency of the data play an immensely crucial role. In this scenario, humans become the linchpin, taking charge of curating datasets, identifying anomalies, and grasping nuances that machines might inadvertently overlook.

These (data & infrastructure) form the basis of a robust ML development. While infrastructure is straight-forward - higher computing power for large datasets & complex algorithms - data is by-far the least understood aspect of ML development cycle. Data directly relates to domain, which isn't understood by all. Responsible use of AI is mainly the reflection of data instead of the model. Hence, bias & fairness should be given equal importance while evaluating & assessing data.

It's not a one-size-fits-all; it requires understanding the nuances of different ML algorithms and how they can solve particular problems or optimize processes. Startups should aim to build their experience in a way that they can swap out the underlying AI engine. For example, while ChatGPT is currently the best model that can change, we should always be open to the possibility of a better model emerging. Again, the focus should be on user experience, not the model's capabilities. Sometimes using a lower power model, like ChatGPT 3.5, makes more sense as it is faster than ChatGPT 4, so users will not experience a delay.

Incorporating machine learning into your business strategy involves thorough implementation and evaluation of ML models. Start by preparing your data, training models, testing their performance, and deploying them to production. Regular monitoring and updates are crucial to maintain accuracy and reliability. Metrics and feedback mechanisms help measure results and impacts on business goals. Compare your models with benchmarks to assess effectiveness and efficiency. From my experience, ongoing evaluation ensures ML models remain aligned with dynamic business needs, driving better decision-making and strategic insights.

One of the biggest mistakes I have observed is that many companies create a use case and implement the ML techniques and tools, and then don't logic test the results. No ML process is going to be perfect without continual feedback and modifications to the output. Is the output usable, does it save time, money, or solve a problem? Create a continual feedback loop of the data that INCLUDES the human element for the best results.

First important thing is to finalize the performance metric on which the model performance will be measured, e.g. F1-score. This should be signed off with the business stakeholder for the problem that you are solving with this model. Business should be aware of its implications before this is finalized. Having only one metric helps in comparison. If two metrics are chosen - precision or recall, both may work - then, none of them end up working. It creates unnecessary confusion and doesn't help concretely end the performance evaluation & hyperparameter tuning of the model. Ongoing reassessments of the model are important to overturn data drift, model drift or concept drift.

While data science may appear complex & large, it typically forms 5-7% of the business. From this perspective, one needs to take a completely different perspective while communicating to stakeholders. It has to be business-oriented, not model or algorithm-oriented. Yet, some key elements that business needs to know are - which variables did the model consider, which ones turned out to be important / significant, which sensitive features (age, gender, race, ethnicity, etc.) did the model had bias towards, in which scenarios should the model outputs be ignored and instead use subject matter experts to take decisions. All of these have to be in plain & common language. If possible, by incorporating business metrics. That would be a big plus.

Effective communication is key, and it is the responsibility of the leader to communicate: 1. Vision and strategy (who we will win using ML models). 2. A set of principles to guide team member's decision-making.

In a financial institution, we developed a machine learning-based fraud detection system using historical transaction data. The system employed techniques such as anomaly detection & supervised learning to identify suspicious transactions in real-time. By continuously updating the model with new data, we significantly reduced the incidence of fraud, safeguarding both the institution and its customers. Use predictive analytics to optimise supply chain operations. In a manufacturing company, we implemented a machine learning model to forecast demand and streamline inventory management. By analysing historical sales data, the model provided accurate demand forecasts.

One point missed out is Responsible Use of AI (RUAI). While all the above steps are important, for some industries like healthcare, the most important step is RUAI. This should be incorporated from the first step of data collection - is there bias in this data for certain sensitive features like age, gender, race, ethnicity, etc. How is the model performing for Social Determinants of Health (SDoH) - does model output get biased to certain economic statuses (favors rich), races (favors white), gender (favors men), etc. There are bias testing & risk mitigation steps that should be followed to ensure model being fair & unbiased to these sensitive features. Bias-drift or fairness-drift should be periodically monitored like model performance.

Do you need to use AI (ML / LML) for this specific application in the first place? The ongoing cost associated with the ML project. You first need to refine your data for established companies with a lot of data. If data is the new oil, then companies like Scale AI are the new refineries.

Just go with the plan. Plan includes the MLOPs processes. Analyze deeply the application and the impact of incorporating ML in your business - May be your business really don't need any ML technology. After doing the feasibility study, go for its ethical applications within your business. Finally follow the golden ML steps, 1. Data collection / Data synthesis 2. Pre-processing 3. Model architecture planning 4. Training of model 5. Evaluating the model. Repeat the steps if the model is not performing according to the baseline performance.
