How do you document your Machine Learning code for future reuse?

I prefer to 1) Write clear and concise comments throughout the code to explain what each section does and why. 2) Save the model and its hyperparameters along with the code, so it is easy to reproduce and fine-tune later 3) Organise the code into modular components, making it easier to reuse individual parts in other projects.

There are different ways to document your machine learning code, depending on the level of detail and the audience you are targeting. Here are some general tips for documenting your machine-learning code: ? Use comments and docstrings to explain the purpose, functionality, and parameters of your code. ? Use descriptive and consistent names for your variables, functions, classes, and files. ? Use version control tools to track and manage the changes in your code. ? Use configuration files to store the settings and parameters of your machine-learning experiments. ? Use logging tools ? Use documentation generators to create HTML or PDF documents from your code comments and docstrings.

Commenting ML code may not be enough for anyone else to reuse it in future projects as you may not anticipate how the code or project will be used. You may need to add reference to data sources, environment (Hardware, Containers,....), docker image, data base schema..... Without context the source code for training and/or predict a DS model may not be that useful. This is the difference between documenting a ML project and commenting ML code, IMHO.

AI Code companions not only can automatically generate code suggestions but also document your code. I use Amazon CodeWhisperer in my VS code to add comments, as well as vice versa I write comments so AI could generate code based on them. Using AI for documentation saves me a lot of time and helps to add more descriptive details.

An example would be if our api function is leveraging an embedded vector generation service class, and we should note why we need to use it in this specific instance. That root embedded vector generation service class should contain information around the choice of model.

I've witnessed projects where fragmented or inconsistent documentation led to significant misunderstandings, eventually impacting the model's accuracy and deployment. You must ensure all the team to follow rules during documentation, for example let's say all the team must follow Numpy documentation style. This will help to avoid misunderstanding and easier communication between the team.

I believe in following a consistent form of documentation so that it makes the code user-friendly. Along with this, proper explanation of custom functions are extremely important to be documented at their definition with some usage if possible. I also like to document some exception handlers and little blocks like these because they enhance the essentiality of the code.

I prefer if you document your code alongside every change with the codebase. This will make it easier than finishing the project then documenting what you did in the whole project and also it will keep your documentation up to date,

"Write Once, Read Many Times": Following the principle of "write once, read many times" helps ensure that your code is understandable not only to you but also to other team members or collaborators. Revision and Updates: Code documentation may need revising and updating when you make changes or improvements to your code, such as adding new features, fixing bugs, or optimizing performance.

Do a review of a documentation created by someone else, and ask for reviews. This shows which elements are missing. The ultimate goal is to create a documentation that is as good as a manual for LEGO bricks.

This comes with experience, you have to check how others document and try to mimic the same. Until you develop your documentation skills and able to do it with ease.

Documentation is directly correlated to an understanding of the architecture of the system, and the business goals of the system. Furthering your understanding of how this is used and why greatly improves documentation for others.

One thing I have noticed while documenting is that reading more and more code documentations makes it much easier to document one's own code. Along with this, there is one word to improve in anything - practice!

In machine learning, it's essential to document both the data and the outcome. Unlike traditional software development, where results are predictable for a given input, machine learning results can vary due to factors like randomization. To help others reproduce your results, note the data timestamp, set a fixed random seed, and report the outcome for that particular dataset.

Tools can be used to document efficiently your code. For example, in Python, a Notebook can be extremely useful to explain your code and thinking with markdown cells in between you code cells. It can be useful too to organize your code and share it to other people, with interactive examples.
