It's important to understand why it is hard in simple mathematical terms. Computers convert images into mathematical functions that read the "slope" of change in color or brightness. That's how it finds edges and shapes. Lower light means lower color and brightness, thus reducing the slope and making changes harder to quantify. Other light effects that help create edges, such as ambient occlusion, are too hard to pick up on when the light bouncing is all but absent.

For example, if you have a lot of light, you can use any model. But if you have very little light, you might want to use RetinaFace or ULFGFD.

These models, varying in accuracy and speed, offer solutions for detecting faces in low-light conditions, catering to diverse needs in detection accuracy and speed.

Not really preprocessing but extremely important is to run a blur detection algorithm along with your face detection, just to make sure you're not using a blurred image, and to make sure you're face detection is not flawed due to low light. Most of the time in low light you'll encounter images that are moved every few frames, so you get so called motion blur every 1 out of 3-5 frames. A method that works well is to train a binary classifier on faces with and without motion blur. You can use an existing face recognition foundation model that outputs embeddings for each evaluated image and train a simpler NN on the embeddings for a smaller set of blurred and not-blurred images.

There are a few things you can do for pre-processing: Adjusting contrast is an obvious one, but not always effective. Increasing contrast can enhance the visibility of edges. It works even better if you use adaptive contrast, that way you aren't over contrasting the well lit images/video when it's daylight. Tuning the histogram is helpful as well to bring out the edges. Edge Detection: You should already be using this in your pre-processing. Tuning your edge detection settings, such as threshold and even the algorithm you are using, can be helpful here.

Preprocessing low-light images before applying face detection models is advisable to enhance their quality and mitigate noise and blur. Techniques like Histogram Equalization enhance image contrast by redistributing pixel values, aiding visibility of facial features. Gamma Correction adjusts brightness via power-law transformation, balancing illumination and contrast. Denoising eliminates noise through filtering or smoothing operations, resulting in clearer, sharper images. Employing these preprocessing methods substantially enhances low-light image quality, aiding subsequent face detection model accuracy.

When the light is too bright or too dark for the camera to see things well, there are several open-source GitHub libraries to enhance the images. The library Illumination-Adaptive-Transformer makes the pictures look better by changing the colors and brightness of the pictures. It is very fast and easy to use and can help the computer to find and label all objects in the pictures better when the light is not good.

To advance low-light face detection consider a pipeline that first employs OpenCV to enhance image brightness and contrast. Follow this with PyTorch for training a model on this preprocessed data, optimizing for dimly lit environments. Incorporate MTCNN within this pipeline for robust face and landmark detection, ensuring it's fine-tuned to recognize features in shadows. I typically use a convolutional neural network (CNN) with Leaky_relu for the activation function and max_pooling for the pooling layer, which has yielded decent results. However, while this is a good learning approach, I recommend reusing pre-trained models, such as ResNet and VisionTransform. These can be found in the Pytorch library, and are more efficient in terms of performance.

OpenCV provides functions and algorithms facilitating image processing, face detection, recognition, and alignment. PyTorch, a robust framework, allows creation and training of deep learning models (e.g., YOLOv3 or RetinaFace) for computer vision tasks. MTCNN, a library implementing a multi-task cascaded CNN, detects faces, landmarks, and quality scores within a single network. These libraries collectively enable loading, preprocessing, transforming, augmenting, defining, training, evaluating, and displaying low-light images accurately and swiftly, making Python a favored choice for such applications.

Face detection model evaluation in low-light images involves vital metrics like precision and recall. Precision assesses correct face detections among total detections, while recall measures accurate detections against actual faces. F1-score, combining both, offers a balanced performance evaluation, particularly valuable with imbalanced or unknown face counts. IoU (Intersection over Union) evaluates predicted bounding boxes' overlap with ground truth boxes, indicating face localization accuracy. These metrics aid in comparing and selecting optimal models for low-light face detection, considering both accuracy and completeness in the assessment.

These metrics are not just statistical measures; they reflect an AI’s ability to discern accurately in the challenging interplay of light and shadow. In my experience, the nuanced use of IoU provides a deeper layer of understanding, ensuring the AI does not just detect, but accurately interprets the subtle contours of the human face. these metrics are crucial signposts on the path to creating AI that performs with reliability, even in the most imperfect lighting conditions.

Most important is the real-world conditions. A model's robustness is proven when it consistently recognizes faces across different ethnicities and ages in various low-light scenarios. And, the impact of false positives on the application's usability should be assessed. Like, in security settings, a high rate of false alarms could be problematic. Having a user-centric evaluation, where the end-users rate the detection's effectiveness, can help with invaluable feedback for further model refinement.

A single model doesn't have to do everything - consider a cascade of algorithms for detecting motion blur, followed by image enhancement, and finally face detection. Similarly, consider the business goal - is low-light a real obstacle or a legacy residue?

In my experience consider the following, 1. More Datasets : Collect more datasets to enhance network performance. Collect more images with exposures to captured light effects. Add video datasets to support dynamic inputs. 2. Test Benchmarks of your Network Performance: Test benchmarks with images and videos in low light conditions. We have tried objects being present in 10 frames on an average in varying light conditions. Start with good light conditions and train the models of the same image in low light conditions with the object being in the same frame in varying images. This will improve training of test benchmarks.

Use infrared (IR) or thermal imaging cameras that are less affected by low-light conditions. IR sensors can capture heat signatures emitted by the human body, aiding in face detection even in darkness. Apply adaptive thresholding techniques to segment facial features from the background in low-light images. These methods adjust the threshold dynamically to handle varying illumination conditions.

Use a light. Light up the room so that you can take a better picture. Don’t expect neural network magic to replace night vision.

Try to use existing implementations for face recognition to further train on smaller sets of data specifically for low light. You can start with some good contrast and lighting images and manipulate them to reduce dynamic range (increasing contrast for example), then train a low light face detection on those images on top of the MobileFaceNet model, for example.
