We found using sample test datasets in the pipeline and integrating unit test cases within python scripts in the data pipeline to ensure that we are validating test cases every time the data pipelines are running. We would generate alerts in case the test cases are not being fetching expected results.

ETL Performance for Large Data Sets becomes critical if processing window is limited. And more than often, it will be limited, varying from 2-6 hrs usually. It will be difficult to guess at the time of development but adding a stage in Project to do a Stress test in Pre-Prod environment is good idea. The purpose should be, Volume and Processing performance. Identifying bottlenecks and improving on those in each iteration. Try bulk inserts as much as possible for large data sets to avoid checks. Its time consuming so plan the phase accordingly.

In most cases, it is advisable to use a sample of production data with a significant size. The production data sample is important because synthetic data does not respond equally to processes such as anonymization. The fact that it is a large sample size may impact the performance of the servers, but tests can be planned in periods of time of low concurrency and in specific test environments.

Sample or artificially generated datasets can be an excellent idea for obtaining a large volume of data that can be adequate for volume and performance testing. However, particularly with ETL jobs, there is no substitute for real data to truly test the performance of the data. For this reason, a production dataset, appropriately anonymised and desensitised, can be a valuable asset for performance testing. Another tip is to artificially inflate the production dataset, for example, by stacking it multiple times to achieve the required volumes.

I would always highly recommend that test data sets should resemble production data, and usually the better way to do this is by using production data. Always use up-to-date sets and refresh them as much as possible when concluding the tests. But with many restrictions in terms of security and data sensitivity, today synthetic data comes as a nice approach to mimicking production data. Of course, this comes with a price. The more data and relations you have, the more complex and resource-intensive this process might become. Be aware of costs and execution times when creating synthetic data.

It is particularly beneficial to identify the point at which the system fails or 'breaks'. For this reason, it is sometimes advisable to test the system until it reaches its breaking point, allowing you to gauge how close your production workloads are to this limit. This is especially important in processes where data volumes experience significant growth over time.

At almost every step, there is a moment to pause and check if things are working as expected. I am a huge fan of using descriptive analytics at each step to act as a monitor and guide to ensure the systems are moving in the right direction. For the descriptive analytics, keep it simple!

So it depends at what stage and what has triggered you to test the performance of ETL. Is it because of some upgrade/migration or is it because you are going live for the first time with the specific ETL or is it because you have made some changes in the DB design or code level changes ? If you already have a Prod system with the ETL running, the best approach is to pull all your data into a test env with identical config and H/W and then simply execute the ETL with almost same load as with real Prod ENV. But in cases where you are doing this kind of testing in an entirely new env. and you do not have any baseline to compare it with, you have to define an SLA. i.e. expectations and then collect all the stats such as CPU, memory etc
