How can you speed up NLP systems?

Using a pre-trained (foundation) model and fine-tuning it for your use case is a best practice that should be done in almost all cases. However, when doing so, one should consider the effect choosing the suitable model for the task can have. While currently, it seems like the trend to use a powerful generative model such as GPT for every task, in many cases, smaller, more specialized, and less resource-intensive models can perform equally or even better than the current big foundation models. For example, if you only want to extract some data from a text or sort it into a well-known category, a classification model such as RoBERTa or BERT might perform better than GPT while also being less resource intensive and a lot faster.

Some thoughts about it: - Differentiate between data and models more clearly if beneficial - Address trade-offs in terms of potential loss of information or nuances, especially in more complex tasks - Reducing dimensionality can often improve speed and reduce memory/storage requirements, claiming that it can improve accuracy may need further justification

From my perspective, we can improve performance by incorporating Causal ML into LLM pipeline. Causal ML can be used to : -Improve Prompt Engineering -Improve LLM accuracy. Of course that means having a more complex system where we try to slightly change prompt and see the LLM results in order to build a causal graph. Furthermore, like XAI we will learn more about our LLM. CausalML can also explain the effect of changing the Language Model from something more simpler like BERT or a more complex LLM so that at the end we can use efficiently routing strategies, this will result in speed improvment also. We have packages available in python for causalml. Anyway the idea is combining power of complex generative models with reasoning systems.

Just to say that we can use indeed causal with PCA or t-SNE, I'm not talking about latent semantic analysis because the goal would be to reduce causal ml features to get the most influent features, the idea is to not finish with a too big causal graph (see my next comment)

Maybe also consider briefly mentioning potential challenges or limitations of parallelization. For instance, not all tasks can be easily parallelized, or there might be overhead costs associated with splitting and merging data.

From my previous perspective, we can easily parallelize the way we get causal inference, indeed we needed to slightly change the prompt to see performance effect, this can be done in parallel. For the data-pipeline or chaining, we should always keep in mind when using gpu that host to gpu data transfer has a cost and this cost cannot be reduce, so carefully decide what will be done on a classic cpu and what will be done on a GPU

To speed up NLP systems, optimizing code and algorithms is essential. For instance, you can remove loops and conditions that slow down code execution or employ vectorization and broadcasting for operations on data arrays. Additionally, choosing suitable algorithms and methods, like dynamic programming or heuristics, for specific NLP tasks is crucial. Optimization not only enhances NLP system performance but also reduces the likelihood of errors and bugs.

Speeding up NLP systems involves a combination of techniques to optimize their performance. Employ model quantization to reduce the memory footprint of large language models. Utilize hardware acceleration, such as GPUs or TPUs, to enhance processing speed during inference. Implement model pruning and compression techniques to remove redundant parameters and make the model more lightweight. Leveraging efficient tokenization methods and caching intermediate results can also contribute to faster NLP system execution. Experimenting with these strategies while maintaining acceptable accuracy levels can significantly improve the speed of NLP applications.

Maybe it would be beneficial to add visual aids. Some diagrams or flowcharts could elucidate the points, e.g. on parallel processing or dimensionality reduction. This might make the content more engaging and comprehensible for readers.
