Lastly, whenever you can, use exceptional datasets - they make a world of difference.

Pre-training models on large-scale datasets and fine-tuning them on specific tasks have shown promising results. Models like BERT (Bidirectional Encoder Representations from Transformers) and GPT (Generative Pre-trained Transformer) have demonstrated the effectiveness of transfer learning in NLP tasks. Continual research in pre-training techniques and domain adaptation can lead to further improvements.

Another consideration is the quality and biases in the training data used for pre-training the models. The models learn from large-scale datasets, which can inadvertently contain biases present in the data. These biases may influence the model's outputs, leading to biased or unfair results. To ensure quality data for NLP models, focus on accurate and diverse data collection, consistent labeling, preprocessing, feature engineering, data validation, and regular updates. Address imbalanced data with techniques such as oversampling or synthetic data to create robust models that overcome NLP limitations.

During evaluation, it’s key to not only focus on the technical metrics mentioned here but also have metrics that capture the business or customer value. Say you’re building an NLP application with text classification or sentiment analysis. Given the model’s current performance, would a 1% accuracy improvement significantly improve the ROI? Sometimes the models are good enough where a 1% improvement won’t move the needle for the customer or business. Instead, you could get greater ROI from other activities such as investing in proprietary data or enhancing the user experience. Depending on the use case, other important KPIs could include latency, inferences per second, total cost of ownership, ability to promptly adapt to data changes, etc.

Explainability is key in model evaluation. Depending on your model, different tools apply. For instance, LIME and SHAP offer broad applicability but may be resource-intensive for complex models. ELI5 provides visualization across various ML frameworks. Attention mechanisms in NLP show the focus on specific models like transformers. Microsoft's InterpretML suits models are compatible with its interpretability techniques. Counterfactual explanations offer broad insights but need careful implementation. Always align the approach with your model and task complexity.
