to make ML reproducible you need a good MLOPS architecture that will allow model's performance to be recorded, data versioning and etc. We now have more tools in this front from mlflow to AWS model monitor and many more SaaS offerings ...LLMs will make this area to move even further....academic researchers should learn DevOps as a foundation and pick the right tools for them....

The issue: absence of precise documentation regarding preprocessing steps and random seed settings. We spent valuable time backtracking to replicate the model's original state. I vote for something that can be kept in ASCII file. And absolutely include code run instructions! And don't you forget to comment the code itself! LaTex is a programming environment that produces pdf files. And sometimes old pdfs cannot be opened. Go ASCII!

How to document your work: 1. Write your comments in the markdown cells of Jupyter as if you're writing a blog post on your work. 2. Treat the reader as if they are an intern sitting next to you and you are talking to them. Assume no knowledge. 3. Inject some personality, even humor - comments are for humans and not machines. 4. State your assumptions and hunches, your guesstimates and theories. 5. Don't be afraid to be wrong, failure is part of the R&D process and documenting what didn't work is as important as documenting what did.

Data Sharing & Licensing: Share data openly or guide accessing similar data. Apply suitable open-source license for code and data usage terms. One thing I've found helpful in Jupyter is wrapping code in a function and then immediately calling the function, rather than writing code directly into the cell. This helps because it enhances code reusability, maintainability, and readability. By encapsulating code within functions, you can easily reuse the same logic across different cells or notebooks, making your workflow more efficient and organized. Additionally, function calls provide a concise way to execute complex operations, making it easier to understand the code's purpose and structure. This helps with all of the concepts above: replication, documentation and collaboration.

ML model performance is a function of data, preprocessing, training, and post-processing methods. Each of these steps will need to be version controlled to ensure reproducibility. Of these, data is the hardest to version control due the sheer size, and there will a trade-off in storage cost vs. traceability. Moreover with stochastic optimization methods, even identical data/methods/hyperparameters can end up with models with different local minimums. A set of benchmark tasks will be needed to make sure each retrained models can successfully reproduce performance on the same set of tasks.

Version control of the data, model, and training pipeline is also important for reproducibility and collaboration. Constructing a machine learning model is often an iterative process, where we would go back to gather more data, conduct additional feature engineering, and tune the model with a different set of hyperparameters. Keeping track of modified data and updated models can reduce computing waste due to repetitive training of identical models. Moreover, it helps improve collaboration, allowing people to compare different models readily.

To make machine learning results effective and result-oriented it is essential to be in the field and get to know the customer closely.
