How can you interpret the slope of a regression line?

The concept of "best fit" appears intuitive, but does not have a unique translation to mathematics. The standard method is to take the sum of squared errors as a measure of the fit. Then the best-fitting line minimizes the sum of square errors (where error is the deviation of the regression line from the data point). But, if there are a few outliers in the data, the line can deviate greatly from the main tendency of the data. So the answer to the question is dependent on a set of hidden assumptions about the nature of the data. There are many different ways to assess fit, and determine what "best fit" means. Different types of fits may be useful for different purposes.

If Y-axis is profit and X-axis is cost, the slope tells you how much profit you can make per unit of cost on average. In the US, IT industry had the highest slope in 2022, guess which industry had the lowest?

A regression line is a statistical estimate of the relationship between two variables, such as height and weight. The slope of the line estimates on average how much one variable increases for a unit of increase in the other variable. For example, one additional inch of height may correspond to an average additional 2 pounds of weight.

In linear regression model, we assume that the relation between the independent variables and the dependent variable is linear. It is written with the formula y = bx + a. In this equation, b is called the slope of the regression line and a is called the intercept. The slope of this line gives an insight on the relation of y and x. It indicates the magnitude of the relation and also, the direction of the relation ( it may be negative or positive). In a machine learning algorithm, the main aim is to select the a and b such that the difference between the predicted and the actual values becomes minimum.

Collecting new data or gathering additional observations can be helpful. However, in my experience, improving R-squared alone does not improve the model performance with the new data. Thus, it is important to formulate the goal of improving the fit. Is it to explain the variance? Or is it to identify as many risky consumers as possible? R-sq can help as an instrument, not an objective.

Improving the fit of a regression line should not be treated as the end goal in and of itself. Creating a set of unbiased regression coefficients or features, that accurately describe what you want should. If you only wanted to improve the fit of the regression line at all cost, you can keep adding and removing variables until you hit an exceptional fit by chance. Instead, identify the likely underlying causes of the relationship and include all variables that reasonably influence this relationship or can be used as proxies for ones that do. This prevents overfitting, while still leading to unbiased estimators.

To improve the fit of a regression line, several strategies can be employed. Collecting more data can refine the estimation of the relationship between variables and increase the reliability of the regression analysis. Considering nonlinear relationships or adding polynomial terms may capture more complex associations. Additionally, outliers and influential points should be examined and addressed to ensure they do not unduly influence the slope estimation.

For a good regression model, the first parameter you should study is R-squared. We need to evaluate the adjusted R-squared and predicted R-squared. Predicted R-squared indicates how well a regression model predicts responses to new observations. The predicted R-squared is calculated by systematically removing each observation from the data set, estimating the regression equation, and determining how the model predicts the removed observation. Regression models have certain underlying hypotheses - i.e. that variability of the data is constant across the whole range of X (so-called homoscedasticity). Transformations of Y can dramatically change that and impact on the significance of the coefficients, so proceed with caution. Also be careful when adding variables - if you have two variables that are perfectly correlated, the estimates will be non-significant because of that (collinearity). Each added variable should ideally explain a new piece of the puzzle, a new part of the variability of Y.

When interpreting the slopes or the beta coefficients, consider the interpretations in the context of the research question, datasets used and it’s limitations.

Regression dilution, or attenuation bias, is a significant concern in linear regressions, impacting the accuracy of slope coefficient estimates. It occurs when there's measurement error in the independent variable (x), leading to an underestimation of the true relationship between x and the dependent variable (y). This results in a smaller observed slope than the actual effect of x on y. Addressing regression dilution involves improving measurement precision or using statistical techniques like instrumental variable analysis to correct for errors. Recognizing and mitigating regression dilution is crucial for accurate interpretations in linear regression analyses.

Mathematically, if we standardise X and Y, instead of simply mean-centering, by dividing each mean-centred value Xmci or Ymci by the standard deviation of X or Y respectively, the numerical value of the regression slope "beta" will coincide with the numerical value of the Pearson's correlation coefficient "r" for the same dataset.

There are several assumptions about the data when using the linear regression model. First and the most obvious assumption is that the data has a linear trend. In multiple linear regression, the predictors are assumed to be independent of each other (non-colinearity). The residual errors do not depend on the predictor X (i.e. homoscedasticity), while X is an independent variable. Also, the residual errors (i.e. noise in Y) are assumed to be drawn from the same normal distribution independently.
