The model however would be useless, because it would never detect a spam e-mail or a fraud. In this case the most important metric to consider would be recall, because we are especially interested in predicting the positive class correctly. In other use cases like medical tests, precision is more important. When both True Postives and False Negatives are equally expensive f1-score is a good choice.

Apart from oversampling, undersampling, SMOTE here are some ways to tackle imbalanced dataset: 1. Try new threshold, there are various ways to find new threshold. Using 0.5 is not the only way. 2. Try collecting more data, in some scenerios it is possible. 3. For images, and text try using open-source data or data from internet. There may be some manual labelling required. 4. Regardless, the model won't have that much generalization capabilities since you are dictating more through the domain knowledge representation.

Beware of claims that class imbalance doesn't matter in RandomForest. It can make some types of variable importances inaccurate. Note the impact on statistical inference. Oversampling will decrease the variance more than SMOTE does, and thus, skew the confidence intervals and p-values. You could model this imbalance itself and that is often better than trying to artificially change the balance. Zero-inflated, hurdle and tweedie models are used for modeling very rare outcomes. These distributions like zero-inflated Poisson and zero-inflated negative binomial ones are often assumed to be useable only in regression but they can easily be integrated into ML models like the multinomial naive Bayes one. XGBoost has gamma, tweedie, etc.

There are other techniques also to handle class imbalance while modeling. Few shot learning algorithms try to learn from very limited amount of data. Some few shot learning algorithms use transfer learning where model trained on large dataset of different domain are adapted to work for smaller dataset of a different domain to which the use case belongs. Idea is that model can transfer the general knowledge to the task in hand. But data scientists neglect a highly efficient method: threshold-moving (the threshold that converts probabilities to class labels). Its default value is 0.5 in all pre-made ML algorithms. but this value is not always the optimal choice.The general idea is as follows (though there are more efficient ways): You fit your model to an imbalanced dataset, predict the probas, & for each threshold in your defined thresholds:convert the probas in class labels; if the score(evaluation metric) is better than the best score, you adopt this new threshold & use it on new data.

In a two-class scenario with a low first-class occurrence, using a more extreme cutoff enhances performance. Also, addressing data before resampling is crucial, employing: - Stratification: During data splitting, ensuring representative samples from both classes. - Subsampling: In preprocessing and resampling, aligns majority class data with the minority's frequency. If R programming language is used with tidymodels, employ step_downsample() or themis::step_rose() functions. The ROSE method is notable for oversampling. Crucially, integrate subsampling into resampling to avoid inaccurate performance estimates. Another thing to consider is the loss function you use. In classification problems, it is usually binary or categorical crossentropy. However, after training for some time on crossentropy, you may want to switch to training on categorical hinge. Even though the hinge loss is supposedly used for SVMs, it can be used elsewhere too. As you have already some decision boundary formed in the training, doing some more training with hinger loss pushes predictions away from the boundary, and in my practice can very well improve the precision/recall pair.
